DIAFORGE: Enhancing LLM Reliability for Enterprise Tool Interactions

TLDR: DIAFORGE is a three-stage pipeline that improves how Large Language Models (LLMs) interact with enterprise tools. It synthesizes multi-turn dialogues focused on clarifying ambiguous user requests and distinguishing between similar tools. By fine-tuning open-source models with this data and evaluating them in dynamic, interactive settings, DIAFORGE significantly boosts tool-invocation accuracy and reduces errors compared to leading models like GPT-4o and Claude-3.5-Sonnet, making LLMs more reliable for business applications.

Large language models (LLMs) are becoming increasingly vital for automating tasks by interacting with enterprise applications through their APIs. However, these powerful AI systems often struggle with common real-world challenges, such as distinguishing between very similar tools or handling user requests that don’t provide all the necessary information. This can lead to errors, inefficiencies, and even risks in business operations.

To address these critical issues, researchers have introduced DIAFORGE, a new approach designed to make enterprise tool-calling LLMs more reliable and effective. DIAFORGE is a comprehensive, three-stage pipeline that focuses specifically on improving how LLMs handle ambiguity and incomplete information in conversations.

How DIAFORGE Works

The DIAFORGE pipeline consists of three main stages:

First, it involves the synthesis of realistic, multi-turn dialogues. Unlike traditional methods that use pre-scripted interactions, DIAFORGE creates conversations where the AI assistant must actively clarify user intent, especially when multiple tools seem to fit a request. These dialogues are persona-driven, meaning they simulate interactions with different types of corporate users, making the training data highly relevant to real-world enterprise scenarios.

Second, DIAFORGE uses this specially generated data to fine-tune open-source LLMs. This supervised fine-tuning process teaches the models not just to call tools, but to reason through complex situations, ask targeted clarifying questions, and accurately identify the correct tool and its required arguments. The training focuses on models ranging from 3 billion to 70 billion parameters, demonstrating its applicability across various scales.

Third, the system employs a unique dynamic evaluation method. Instead of just checking if a tool call is correct in isolation, DIAFORGE deploys the fine-tuned model within a live, interactive environment. This allows for end-to-end assessment of the model’s ability to complete goals in a conversational setting, tracking its success in selecting the right tool and providing all necessary arguments, alongside other performance metrics.

Addressing Real-World Challenges

Traditional benchmarks for LLM tool use often fall short because they don’t account for the iterative nature of real-world enterprise interactions. Users rarely provide perfectly formed requests. They might omit crucial details, use company-specific shorthand, or describe a task that could map to several similar tools (e.g., “CreateCustomer” versus “CreateUser”). DIAFORGE directly tackles these issues by training models to engage in multi-turn dialogues, proactively elicit missing arguments, and perform fine-grained disambiguation.

The research highlights that models trained with DIAFORGE significantly improve tool-invocation success. On their dynamic benchmark, DIABENCH, these models raised tool-invocation success by 27 percentage points over GPT-4o and by 49 percentage points over Claude-3.5-Sonnet, even when those proprietary models were used with optimized prompts.

To foster further research and development in this area, the team behind DIAFORGE has released an open corpus of approximately 5,000 production-grade enterprise API specifications, paired with their rigorously validated, disambiguation-focused dialogues. This dataset provides a practical blueprint for building more reliable and enterprise-ready tool-calling AI agents. You can find more details about this research in the full paper available here.

In essence, DIAFORGE represents a significant step forward in making LLMs not just conversationalists, but truly operational agents that can navigate the complexities of enterprise environments with greater accuracy and reduced risk.
