PARS: A New Algorithm for Stable Reinforcement Learning with Offline Data

Reinforcement Learning (RL) is a powerful approach for training agents to make optimal decisions. However, traditional RL often requires extensive real-time interaction with environments, which can be risky or impractical in real-world scenarios. This is where Offline RL comes in, allowing agents to learn from pre-collected datasets without further interaction. While promising, Offline RL faces a significant challenge: Q-value extrapolation errors. These errors occur when the agent encounters actions outside the range of its training data, leading to overestimation of their value and potentially poor decision-making.

A new research paper, “Penalizing Infeasible Actions and Reward Scaling in Reinforcement Learning with Offline Data,” delves into this problem. The authors, Jeonghye Kim, Yongjae Shin, Whiyoung Jung, Sunghoon Hong, Deunsol Yoon, Youngchul Sung, Kanghoon Lee, and Woohyung Lim, highlight that a major cause of these errors is the tendency for Q-functions, especially those built with common neural networks like ReLU-based MLPs, to extrapolate linearly beyond the observed data. This linear extrapolation can cause Q-values for out-of-distribution (OOD) actions to be inaccurately high.

Previous attempts to mitigate this issue, such as using Layer Normalization (LN), have helped to some extent by bounding Q-function predictions. However, LN alone doesn’t sufficiently control Q-values outside the data range, especially without online interaction.

Introducing PARS: A Novel Approach

To tackle this, the researchers propose a new algorithm called PARS, which stands for Penalizing Infeasible Actions and Reward Scaling. PARS combines two key mechanisms:

1. Reward Scaling with Layer Normalization (RS-LN): This approach involves increasing the scale of rewards in combination with Layer Normalization. The intuition here is that when the output scale of a neural network increases, it forces the network to learn more fine-grained and expressive features. This enhanced ‘feature resolution’ helps the Q-function better distinguish between actions within the training data range (in-distribution) and those outside it (out-of-distribution). As a result, positive updates from in-distribution actions have a weaker influence on OOD Q-values, naturally suppressing them. The paper illustrates this with a simple example: approximating a function like y=x versus y=5x. A larger output scale (like y=5x) demands a finer partition of the input space to maintain accuracy, and LN helps by consistently confining the input volume.

2. Penalizing Infeasible Actions (PA): While RS-LN helps prevent OOD Q-values from increasing, PA imposes a more direct constraint. It penalizes the Q-values of actions that are far from the agent’s feasible action regions, pushing them towards a predefined minimum Q-value. This ensures a consistent downward trend for Q-values in these ‘infeasible’ areas, without significantly impacting the Q-values within the feasible action region, thanks to a carefully chosen “guard interval.”

Performance and Impact

PARS is built upon the minimalist TD3+BC framework, making it relatively simple to implement with just a few extra lines of code. The researchers rigorously evaluated PARS across a wide range of tasks on the D4RL benchmark, including AntMaze, Adroit, and MuJoCo domains. The results were impressive: PARS consistently matched or surpassed the performance of state-of-the-art algorithms in both offline training and subsequent online fine-tuning.

Notably, PARS excelled in the highly challenging AntMaze Ultra task, where it achieved significant performance improvements over existing baselines. This success demonstrates its robustness and effectiveness, even in complex, long-horizon tasks. Furthermore, PARS also outperformed several goal-conditioned offline RL baselines, suggesting that a well-regularized off-policy RL algorithm can be highly effective without needing specialized architectures.

The paper argues that PARS’s success stems from the synergy between RS-LN and PA, particularly when combined with behavior-constrained policy gradient methods like TD3+BC. This combination allows the policy to explore a wider action space without the risk of Q-value overestimation, which is crucial for both offline learning and smooth transitions to online fine-tuning.

In conclusion, PARS offers a fresh perspective on addressing extrapolation errors in offline RL. By applying simple yet effective adjustments to reward scaling and penalizing infeasible actions, it achieves superior and more stable performance across diverse RL tasks. This work highlights that significant advancements in offline RL can be made through appropriate regularization for out-of-distribution mitigation, rather than solely relying on complex model designs.
