Improving Safety and Interpretability in Autonomous Driving Through Entropy Regularization

Autonomous driving systems promise a future of safer and more efficient urban travel. At the heart of these systems are deep perception networks, which are responsible for tasks like 3D object detection. However, these networks often struggle with real-world challenges such as fog, rain, or sensor glitches, leading to potentially catastrophic errors. Traditional solutions typically involve extensive data training or adding post-hoc anomaly detectors, which can be limited as they assume future anomalies will resemble past ones and offer little insight into why failures occur.

A new research paper, titled Stabilizing Information Flow: Entropy Regularization for Safe and Interpretable Autonomous Driving Perception, proposes a fresh perspective. Authored by Haobo Yang, Shiyan Zhang, Zhuoyi Yang, Jilong Guo, Jun Li, and Xinyu Zhang from Tsinghua University, this work reconceptualizes deep neural encoders as hierarchical communication chains. Imagine these networks as a series of steps, where each layer incrementally compresses raw sensory inputs into more relevant features for the driving task.

Within this framework, the researchers establish two key design principles for robust perception. The first principle (D1) emphasizes a smooth variation of mutual information between consecutive layers, meaning information should flow gradually without abrupt changes. The second principle (D2) dictates a monotonic decay of latent entropy with network depth, implying that as information moves deeper into the network, its uncertainty or randomness should steadily decrease. The paper demonstrates that by enforcing smooth information flow (D1), entropy decay (D2) naturally emerges, ensuring stable compression.

Guided by these insights, the authors introduce a novel entropy-based regularizer called E_loss. This is a lightweight, plug-and-play training objective that doesn’t aim for marginal accuracy improvements but rather represents a fundamental shift. It unifies information-theoretic stability with standard perception tasks, allowing for explicit and principled detection of anomalous sensor inputs through deviations in entropy. When an anomalous input, like a corrupted point cloud, enters the system, it disrupts this smooth entropy profile, causing a noticeable spike that E_loss is designed to amplify.

Experimental validation on large-scale 3D object detection benchmarks, including KITTI and nuScenes, shows promising results. Incorporating E_loss consistently achieves competitive or even improved accuracy compared to baselines. More significantly, it dramatically enhances sensitivity to anomalies, amplifying distribution-shift signals by up to two orders of magnitude. This means the system becomes much better at identifying unusual or problematic sensor data.

The methodology behind E_loss involves treating entropy as a proxy for information content, where lower entropy indicates a more informative code. The loss function penalizes the variance of entropy drops across successive layers within a network block, encouraging a nearly constant compression ratio. This approach differs from traditional Information Bottleneck methods by focusing on the stability and continuity of compression across layers, rather than just the amount of compression between input and output.
