Advancing AI Feedback: A New Approach to Training Better Reward Models

TLDR: This paper introduces Skywork-Reward-V2, a new series of advanced reward models trained on SynPref-40M, a massive dataset of 40 million preference pairs. The dataset was created using a unique human-AI collaborative pipeline that combines human quality control with AI scalability. This approach significantly improves reward model performance across various benchmarks, demonstrating that high-quality data is crucial for developing more versatile and robust AI systems.

A new research paper from 2050 Research and Skywork AI introduces a significant leap forward in how we train artificial intelligence models to understand and align with human preferences. The paper, titled “Skywork-Reward-V2: Scaling Preference Data Curation via Human-AI Synergy,” details a novel approach to building more effective “reward models” – a critical component in teaching AI systems what constitutes a good or bad response.

Reward models are essential for a technique called Reinforcement Learning from Human Feedback (RLHF), which is widely used to refine large language models (LLMs) after their initial training. However, existing reward models often struggle to capture the subtle and complex nuances of human preferences, leading to AI outputs that might not truly meet user expectations. The authors, including Chris Yuhao Liu, Liang Zeng, and Yuzhen Xiao, hypothesize that this limitation stems from the quality and scope of the preference datasets used for training.

A Synergistic Approach to Data Curation

To address this, the researchers developed SynPref-40M, an extensive dataset containing 40 million preference pairs. What makes this dataset unique is its creation process: a two-stage pipeline that combines the strengths of human annotation with the scalability of artificial intelligence. In this “human-AI synergy,” human experts provide verified, high-quality annotations, while large language models assist in automatic data curation, guided by human insights. This iterative process ensures both scale and rigorous quality control.

The first stage involves a small-scale, human-in-the-loop curation where humans verify and annotate data, and LLMs assist with adaptive retrieval of relevant examples. The second stage then scales this process to millions of data pairs automatically, using consistency checks with a “gold” reward model trained on human-verified data. This innovative pipeline allows for the efficient creation of a massive, high-quality dataset.

Introducing Skywork-Reward-V2

Training on a carefully selected subset of 26 million preference pairs from SynPref-40M, the team introduced Skywork-Reward-V2. This is a suite of eight reward models, varying in size from 0.6 billion to 8 billion parameters. These models were rigorously evaluated across seven major reward model benchmarks, demonstrating state-of-the-art performance.

The Skywork-Reward-V2 models showed impressive versatility, excelling in several key areas: aligning with general human preferences, objective correctness (e.g., for math and coding tasks), resistance to stylistic biases (meaning they can judge content accurately regardless of writing style), safety, and “best-of-N” scaling (their ability to pick the best response from multiple options). Notably, even the smaller 1.7 billion parameter variant of Skywork-Reward-V2 outperformed larger, 70 billion parameter existing reward models on average, highlighting the profound impact of high-quality data over sheer model size.

The Importance of Data Quality

Ablation studies conducted by the researchers confirmed that the success of their approach is not just due to the sheer volume of data, but critically, its high quality. They found that simply increasing uncurated data yielded minimal improvements, whereas their carefully curated data led to consistent and significant performance gains. This research underscores a fundamental principle in AI development: the quality of the data used for training is paramount for building truly capable and reliable AI systems.

This work represents a substantial advancement in the field of open reward models and Reinforcement Learning from Human Feedback. It paves the way for future AI systems that are better aligned with human values and can navigate complex tasks with greater accuracy and nuance.
