Balancing AI Values: A New Approach to Multi-Objective Language Model Alignment

TLDR: Gradient-Adaptive Policy Optimization (GAPO) is a novel method for aligning Large Language Models (LLMs) with diverse and often conflicting human preferences, such as helpfulness and harmlessness. It frames alignment as a multi-objective optimization problem and uses adaptive gradient rescaling to ensure balanced progress across objectives. An extension, P-GAPO, allows for user-specific preference integration. Empirical results show GAPO outperforms previous methods in achieving superior trade-offs between helpfulness and harmlessness in LLMs.

Large Language Models (LLMs) have become incredibly powerful, but ensuring they align with diverse human preferences, especially when those preferences conflict, remains a significant challenge. For instance, an LLM needs to be both helpful and harmless, and these two objectives can sometimes be at odds.

Traditionally, Reinforcement Learning from Human Feedback (RLHF) has been a popular method for aligning LLMs. However, early RLHF approaches often optimize for a single, averaged human preference, which struggles to capture the full spectrum of human values. More advanced multi-objective RLHF (MORLHF) methods have emerged, often using techniques like linear scalarization to combine multiple reward functions. While these methods allow for some multi-objective optimization, they frequently face issues like training instability, imbalanced performance across objectives, or leading to overly cautious (harmless but unhelpful) responses.

A new research paper introduces a novel approach called Gradient-Adaptive Policy Optimization (GAPO) to tackle these complex alignment challenges. GAPO redefines human value alignment as a multi-objective optimization problem, aiming to maximize several potentially conflicting objectives simultaneously. Unlike previous methods that linearly combine rewards, GAPO is a gradient-based approach that employs multiple-gradient descent.

The core innovation of GAPO lies in its adaptive gradient rescaling. When optimizing multiple objectives, some objectives might be well-optimized while others still need significant improvement. Traditional multi-gradient descent algorithms can lead to imbalanced updates, where the progress of underdeveloped objectives is limited. GAPO addresses this by adaptively normalizing the gradients for each objective. This ensures that the update direction prioritizes objectives that require more optimization, leading to a more balanced and effective alignment process.

Furthermore, the researchers extended GAPO to P-GAPO, which incorporates specific user preferences across different objectives. This allows the model to achieve Pareto solutions that are better tailored to a user’s unique needs, providing a flexible way to navigate the trade-offs between different values. For example, a user might prioritize helpfulness slightly more than harmlessness, and P-GAPO can adjust the model’s behavior accordingly.

Empirical evaluations conducted on the Mistral-7B model demonstrated that GAPO significantly outperforms existing state-of-the-art methods. It achieved superior performance in both helpfulness and harmlessness, showcasing a better balance between these often-conflicting objectives. The results indicate that GAPO can effectively manage trade-offs, leading to LLMs that are more aligned with a broader range of human preferences without compromising on critical aspects like safety or utility.
