ToolEQA: Equipping AI Agents with Multi-Step Reasoning and Tools for Embodied Question Answering

Imagine an AI agent that can not only see and understand a 3D environment but also actively explore it, think through problems, and use tools to find answers to complex questions. This is the core idea behind ToolEQA, a novel approach to Embodied Question Answering (EQA) developed by Mingliang Zhai, Hansheng Liang, Xiaomeng Fan, Zhi Gao, Chuanhao Li, Che Sun, Xu Bin, Yuwei Wu, and Yunde Jia.

Traditional EQA systems often struggle with inefficient exploration and limited reasoning abilities. They might try to answer a question before gathering enough information or take suboptimal paths, leading to slower and less accurate responses. ToolEQA addresses these challenges by integrating external tools with a sophisticated multi-step reasoning process.

How ToolEQA Works

ToolEQA operates with three main components: a Planner, a Controller, and an Executor. The Planner acts like a strategic mind, taking a question and breaking it down into a series of sub-goals, creating an overall plan for the agent. This prevents the agent from aimlessly wandering and guides its exploration.

The Controller is the dynamic reasoning engine. It considers the current observations, the historical information, and the plan from the Planner to decide which tool to use next. For instance, if it needs to know the size of an object, it might invoke an ‘ObjectLocation3D’ tool. If it needs to move to a different room, it uses ‘GoNextPoint’. The Controller continuously reasons and selects tools, gathering new observations until it has enough information to answer the question.

The Executor is responsible for actually running these tools within the 3D environment. These tools can perform actions like moving the agent, localizing objects in 2D or 3D, cropping images of specific objects, performing visual question answering on an image, or providing the final answer.

Learning to Reason and Use Tools

To teach ToolEQA these advanced capabilities, the researchers developed a unique data generation pipeline. This pipeline automatically creates large-scale EQA tasks, complete with detailed reasoning trajectories. It identifies objects in 3D scenes, extracts their attributes, and then uses advanced language models like GPT-4o to generate diverse questions and their corresponding answers. Crucially, it also generates optimal exploration paths and incorporates reasoning steps and tool usage into these paths.

This process led to the creation of the EQA-RT dataset, comprising about 18,000 EQA tasks. This dataset is vital for training the ToolEQA agent, enabling it to learn how to think, plan, and use tools effectively in various indoor scenarios.

Experiments on several EQA datasets, including EQA-RT-Seen, EQA-RT-Unseen, HM-EQA, OpenEQA, and EXPRESS-Bench, demonstrated ToolEQA’s superior performance. It consistently outperformed existing methods in terms of success rate and efficiency, often achieving higher accuracy with shorter exploration distances. The research showed that fine-tuning the underlying vision-language models significantly boosted ToolEQA’s reasoning ability and tool-call accuracy, leading to even better results.

The ability of ToolEQA to explicitly reason and use tools marks a significant step forward for embodied AI. It suggests a promising direction for creating more intelligent, efficient, and interpretable AI agents that can navigate and understand our complex physical world.
