Hypervolume Optimization: A New Approach to Balanced Text Summarization with LLMs

TLDR: A new research paper introduces Hypervolume Optimization (HVO), a multi-objective reinforcement learning strategy for text summarization. HVO dynamically adjusts reward scores to balance multiple objectives like consistency, coherence, relevance, and fluency, guiding LLMs to generate more balanced and high-quality summaries. Experiments show HVO outperforms existing methods like GRPO and achieves performance comparable to GPT-4, while maintaining shorter summary lengths, without requiring supervised fine-tuning.

Text summarization, a fundamental task in natural language processing, faces a significant challenge: balancing multiple objectives simultaneously. A good summary needs to be consistent with the source, coherent, relevant, and fluent. However, improving one aspect often means compromising another, leading to summaries that might excel in one area but fall short in others.

While large language models (LLMs) have shown impressive capabilities, especially when enhanced with reinforcement learning (RL), few studies have specifically tackled the multi-objective problem of summarization using RL with LLMs. This is where a new approach, Hypervolume Optimization (HVO), comes into play.

Researchers at AI-4-Business of Li Auto Inc. have introduced HVO as a novel optimization strategy. This method dynamically adjusts the scores between different evaluation dimensions during the reinforcement learning reward process. By utilizing the hypervolume method, HVO guides the model’s optimization to progressively get closer to the Pareto front, which represents the optimal trade-offs between conflicting objectives. The goal is to generate summaries that are well-balanced across all important dimensions.

The HVO method is built upon Group Relative Policy Optimization (GRPO) and is particularly well-suited for large language models. It integrates multi-dimensional rewards into a hypervolume computation framework, aiming to maximize the hypervolume. This ensures continuous improvement in the quality of the generated summaries, moving closer to the ideal Pareto optimal frontier.

One of the key innovations of HVO is its ability to efficiently balance multiple evaluation dimensions without needing supervised fine-tuning or a ‘cold start’ initialization. It uses UniEval, a multi-dimensional evaluation tool known for correlating strongly with human judgment, to calculate rewards for coherence, consistency, fluency, and relevance.

Furthermore, HVO addresses common issues found in vanilla GRPO, such as training instability and the problem of summary length collapse. It introduces a new length constraint mechanism to maintain training stability, ensuring that summaries remain concise without sacrificing quality.

Experimental Validation

Experiments were conducted on two widely recognized text summarization datasets: CNN/DailyMail for news summarization and BillSum for legislative content. The Qwen 2.5 instruct version was used as a baseline, alongside comparisons with GPT-4-turbo and fine-tuned PEGASUS models.

The results were compelling. HVO consistently outperformed other methods on both datasets, achieving the highest hypervolume (HV) scores and overall evaluation scores. While GPT-4 showed strong performance in specific dimensions like coherence and fluency, the 7B foundation model enhanced by HVO demonstrated comparable overall performance to GPT-4 in summarization tasks, crucially maintaining a shorter generation length. This indicates better conciseness without compromising quality.

A notable finding was HVO’s more balanced optimization across all objectives compared to GRPO, especially in the early stages of training. GRPO tended to prioritize fluency and relevance, sometimes at the expense of consistency. HVO, however, optimized all objectives more evenly, leading to more comprehensive and stable performance across all metrics. The superior HV score achieved by HVO further confirms its effectiveness in approximating the Pareto front more closely.

Conclusion

The introduction of Hypervolume Optimization (HVO) marks a significant step forward in multi-objective reinforcement learning for text summarization. By directly optimizing the hypervolume indicator in a high-dimensional objective space, HVO provides a robust framework for balancing complex trade-offs in summary generation. Its ability to achieve state-of-the-art hypervolume and overall scores, outperforming existing methods and rivaling powerful models like GPT-4, without extensive pre-training, positions it as an effective solution for generating high-quality, balanced summaries.
