Enhancing Vehicular Communication with Aerial Platforms and AI for Fresher Data

TLDR: This research explores how High-Altitude Platform Stations (HAPS) combined with Deep Reinforcement Learning (DRL) can optimize information freshness (Age of Information – AoI) in 6G vehicle-to-everything (V2X) networks. The study compares two DRL approaches, DDPG and Fully Decentralized Multi-Agent DDPG (FD-MADDPG), finding that FD-MADDPG significantly outperforms DDPG in reducing AoI and achieving faster learning convergence, especially in dynamic and interference-prone vehicular environments. The future of transportation, particularly autonomous driving, hinges on communication networks that are not just fast, but also incredibly reliable and timely. As we move towards Sixth-Generation (6G) networks, the demand for hyper-reliable and low-latency communication (HRLLC) is paramount for safety-critical applications. This is where the integration of non-terrestrial networks (NTN) becomes crucial, offering redundancy and ensuring continuous communication even in challenging environments.

Among NTN technologies, High-Altitude Platform Stations (HAPS) are emerging as a key player. Operating at an altitude of approximately 20 kilometers, HAPS can provide wide coverage and low-latency links, significantly enhancing communication reliability and ensuring information freshness, especially in rural or infrastructure-limited areas. Think of them as aerial base stations that can fill in coverage gaps and boost network performance where traditional ground infrastructure might struggle.

A critical metric for vehicular networks is the Age of Information (AoI). Unlike traditional measures like throughput or latency, AoI directly quantifies how current the data received by a vehicle actually is. For autonomous vehicles, collision avoidance, and real-time traffic management, having the freshest possible information is vital. Even small delays in updates can pose significant safety risks. This research focuses on optimizing AoI in HAPS-enabled vehicle-to-everything (V2X) networks, which encompass communication between vehicles (V2V), vehicles and infrastructure (V2I), and vehicles and HAPS (V2H).

To tackle the challenge of optimizing AoI and resource allocation in these dynamic networks, the researchers propose using Deep Reinforcement Learning (DRL) techniques. DRL allows communication systems to make intelligent, real-time decisions autonomously. Specifically, two DRL approaches were explored: Deep Deterministic Policy Gradient (DDPG) and its multi-agent extension, Fully Decentralized Multi-Agent DDPG (FD-MADDPG).

DDPG operates on a single-agent paradigm, where each vehicle platoon leader independently optimizes its communication based on its local observations. While this offers decentralized decision-making, it can struggle with adapting to interference from other vehicles, potentially leading to less optimal resource allocation in busy networks.

FD-MADDPG, on the other hand, extends this to a multi-agent framework, allowing multiple platoon leaders to learn and make decisions concurrently without needing a central coordinator. This fully decentralized approach means each agent optimizes its actions based solely on its local observations and rewards, making it more scalable and robust for large-scale V2X networks. It is particularly effective in handling dynamic interference patterns and achieving faster convergence.

The study’s findings highlight the significant advantages of FD-MADDPG, especially when combined with HAPS support. Simulations demonstrated that FD-MADDPG converges faster to a higher reward value compared to DDPG. More importantly, FD-MADDPG consistently achieved much lower AoI values in V2X networks. For instance, when the gap between platoons was 5 meters, DDPG had an average AoI of approximately 13 ms, while FD-MADDPG achieved only 6 ms. As the spacing between platoons increased, DDPG’s AoI significantly worsened, whereas FD-MADDPG maintained a much lower and more stable AoI. This indicates that the decentralized solution handles interference and channel variations more effectively, keeping information fresher across the network and improving overall reliability in HAPS-supported V2X scenarios.

In conclusion, this research underscores the vital role HAPS can play in providing uninterrupted and fresh connectivity in time-critical scenarios, particularly in areas with limited infrastructure. The adoption of FD-MADDPG for resource allocation further enhances this capability, leading to lower AoI, faster learning, and better spectrum utilization.
