TLDR: Deep Ideation is a novel framework that leverages Large Language Models (LLMs) and a scientific concept network to generate high-quality, novel, and feasible research ideas. It moves beyond simplistic keyword associations by capturing complex contextual relationships between scientific concepts. The framework employs an iterative explore-expand-evolve workflow, guided by an Idea Stack and a critic engine trained on real-world reviewer feedback. Experiments show Deep Ideation significantly outperforms existing methods, producing ideas that often surpass the acceptance standards of leading AI conferences.
In the fast-paced world of scientific discovery, generating truly novel and feasible research ideas is paramount. While Large Language Models (LLMs) have shown promise in this area, previous approaches often fell short by relying on simplistic methods like keyword co-occurrence or basic semantic similarity. These methods tend to miss the intricate, contextual relationships between scientific concepts that are crucial for groundbreaking research.
A new framework, called Deep Ideation, aims to address these limitations by integrating LLM agents with a sophisticated scientific concept network. This network goes beyond simple keyword associations, capturing the deeper, contextual connections between terms as established in scientific literature. This richer foundation allows for more scientifically grounded and innovative idea generation.
The Deep Ideation framework operates through an iterative ‘explore-expand-evolve’ workflow. It begins by exploring relationships between initial keywords within the scientific network. Then, it expands the set of keywords, carefully selecting new terms that promise to enhance the research idea’s novelty and feasibility. Finally, it evolves the keyword set and the idea proposal itself, continuously refining them based on feedback.
A key component of this process is the ‘Idea Stack’, which meticulously tracks the research progress across all iterations. This provides the LLM agent with a global perspective, helping it understand the evolution of the research direction and avoid redundant paths. To guide this iterative refinement, Deep Ideation incorporates a ‘critic engine’. This engine is uniquely trained on real-world reviewer feedback, enabling it to provide expert-level evaluations on the novelty and feasibility of generated ideas, much like human peer review.
The researchers behind Deep Ideation constructed their scientific network by analyzing approximately 100,000 PDF papers from top AI conferences over the past decade. From these papers, they extracted keywords and their relationships, forming a vast and dynamic knowledge base.
Experimental results across various AI domains, including Deep Learning, Natural Language Processing, Computer Vision, and General AI, demonstrate the significant effectiveness of Deep Ideation. The framework consistently improved the overall quality of generated ideas by an average of 10.25% compared to other methods. Remarkably, the ideas generated by Deep Ideation often exceeded the acceptance level of top conferences. Human evaluations further confirmed the practical value and inspirational quality of these AI-generated research proposals.
Ablation studies, which involved removing specific components of the framework, highlighted the critical role of both the ‘evolve mechanism’ and the ‘critic model’. Without the evolve mechanism, ideas became static and failed to adapt, while the absence of the critic model led to directionless and uncoordinated idea exploration, significantly undermining novelty and feasibility.
