ZEROSHOTOPT: A Pretrained Model for Efficient Black-Box Optimization Without Tuning

TLDR: ZEROSHOTOPT is a new pretrained model that uses offline reinforcement learning and a transformer architecture to perform efficient black-box optimization. It generalizes across diverse, unseen problems (2D-20D) without needing hyperparameter tuning, matching or exceeding the performance of state-of-the-art Bayesian optimization methods while being significantly faster. The model was trained on millions of synthetic Gaussian process functions and offers a reusable foundation for future optimization advancements.

In the world of artificial intelligence and machine learning, optimizing complex systems is a constant challenge. Imagine trying to find the perfect drug formulation or the ideal settings for a new material, where each experiment is costly and time-consuming. This is the realm of black-box optimization, where the inner workings of a function are unknown, and derivatives (which tell us how a function changes) are unavailable. Traditional methods often require thousands of evaluations, which is simply not feasible when budgets are tight.

Bayesian optimization (BO) has been the go-to method for these scenarios, efficiently balancing exploration (trying new things) and exploitation (refining known good options). However, BO’s effectiveness heavily relies on carefully chosen settings and hyperparameters, which often need to be hand-tuned for each specific problem. This tuning requires expert knowledge and can be a significant hurdle, as these settings don’t always generalize well across different problem landscapes.

Introducing ZEROSHOTOPT: A New Approach to Optimization

A new research paper introduces ZEROSHOTOPT, a groundbreaking, general-purpose pretrained model designed to tackle continuous black-box optimization tasks. This innovative model aims to overcome the limitations of traditional BO by offering robust performance without the need for extensive, problem-specific tuning. ZEROSHOTOPT can handle optimization problems ranging from 2 to 20 dimensions, making it versatile for a wide array of applications.

The core idea behind ZEROSHOTOPT is to leverage offline reinforcement learning (RL). Instead of learning in real-time, the model is trained on a massive dataset of pre-recorded optimization ‘trajectories.’ These trajectories represent how different optimization methods explored and found solutions to various problems. To create this vast training data, the researchers generated millions of synthetic functions based on Gaussian processes, each with diverse landscapes. This allowed the model to learn transferable optimization policies, essentially teaching it how to optimize effectively across many different types of problems.

How ZEROSHOTOPT Works

ZEROSHOTOPT employs a 200-million-parameter transformer-based model, similar to those used in advanced language models. It adapts a technique called Decision Transformer, which frames optimization as a sequence of decisions. The model takes into account past query points (where it has evaluated the function), their corresponding function values, and the desired ‘regret’ (how much better it wants to perform) and ‘length’ (how many evaluations it has left). Based on this historical context, it predicts the next best point to evaluate.

A significant contribution of this work is the creation of a large-scale, open-source dataset comprising approximately 20 million synthetic trajectories. This dataset, generated from 12 different BO variants, provides a rich foundation for training such a powerful model. The model is designed to be scalable, operating consistently across various dimensions and up to 50 total evaluations.

Performance and Efficiency

The evaluation results for ZEROSHOTOPT are impressive. It demonstrates strong ‘zero-shot generalization,’ meaning it performs exceptionally well on completely new, unseen optimization problems without any prior tuning for those specific tasks. It matches or even surpasses the sample efficiency of leading global optimizers, including traditional BO methods, on various synthetic and real-world benchmarks.

Beyond its performance, ZEROSHOTOPT also offers significant speed advantages. When compared to the best performing BO method, GP-LogEI (Matern), ZEROSHOTOPT is substantially faster across all tested dimensions. This efficiency, combined with its generalization capabilities, makes it a powerful tool for practitioners.

Future Directions

While ZEROSHOTOPT represents a significant leap forward, the researchers acknowledge its current limitations. It is primarily designed for continuous, single-objective optimization problems under 20 dimensions, meaning it’s not yet suitable for problems involving discrete choices, mixed-integer variables, or multiple objectives. However, the framework is robust and provides a strong foundation for future extensions.

The team plans to explore expanding the model to handle more complex problem types, reducing its size for more efficient deployment, and further improving its performance to consistently outperform even the best-tuned BO variants. The ability to fine-tune ZEROSHOTOPT for specific domains and incorporate semantic information (like historical data or parameter names) also opens up exciting possibilities for its future development.
