TLDR: VCMamba is a novel vision architecture that combines the strengths of Convolutional Neural Networks (CNNs) for robust local feature extraction with Multi-Directional Mamba State Space Models (SSMs) for efficient global context modeling. This hierarchical hybrid design achieves superior performance on image classification and semantic segmentation tasks, demonstrating high accuracy with significantly fewer parameters compared to existing state-of-the-art models.
In the rapidly evolving world of artificial intelligence, researchers are constantly seeking new ways to build more powerful and efficient systems for understanding images. Traditionally, Convolutional Neural Networks (CNNs) have been the workhorses of computer vision, excelling at capturing fine-grained local details in images. More recently, Vision Transformers (ViTs) and State Space Models (SSMs) like Mamba have emerged, offering impressive capabilities for understanding global context and long-range relationships within data. However, each of these approaches has its own set of strengths and limitations.
CNNs, while great for local features, can struggle with understanding broader, global patterns due to their fixed receptive fields. ViTs, on the other hand, are excellent at global reasoning but often come with high computational costs, especially for high-resolution images. Vision SSMs, including variants like VMamba and PlainMamba, offer a promising balance of performance and efficiency, particularly for long sequences, but they sometimes don’t capture the rich, dense local features as effectively as CNNs in the early stages of processing.
To bridge this gap and harness the best of both worlds, researchers have introduced VCMamba, a novel vision backbone that integrates the robust local feature extraction of CNNs with the efficient global context modeling of multi-directional Mamba SSMs. This hybrid design aims to create a superior feature representation while maintaining computational efficiency, especially for high-resolution images.
How VCMamba Works
VCMamba employs a hierarchical structure, meaning it processes visual information at multiple scales, much like how the human brain processes visual input. It starts with a “convolutional stem,” which is essentially a set of initial convolutional layers that perform the first steps of feature extraction and reduce the image size. This is a common and effective strategy in modern vision models.
Following the stem, VCMamba uses four stages of feature extraction blocks. In its early and intermediate stages, VCMamba primarily relies on convolutional feed-forward network (FFN) blocks. These blocks are designed to efficiently extract rich, multi-scale local features, similar to the powerful local processing capabilities of CNNs. They use a combination of 1×1 and 3×3 convolutions to expand channel dimensions, mix spatial information, and then project features back, ensuring stable training and introducing non-linearity.
As the model progresses to its later stages, particularly the final stage, VCMamba transitions to incorporating Multi-Directional Mamba Blocks. This is where the model shifts its focus to efficiently modeling long-range dependencies and global context across the feature maps. These Mamba blocks adapt the selective scan mechanism, a core component of Mamba SSMs, for 2D visual data. They achieve this by employing a multi-directional scanning strategy, processing visual tokens along four distinct, spatially continuous paths (like row-wise and column-wise “snake” patterns). This ensures that the model captures comprehensive 2D spatial relationships while maintaining the efficiency of 1D sequence processing.
The outputs from these multiple directional scans are then aggregated, providing a combined representation rich in multi-directional context. This unique hybrid and hierarchical design allows VCMamba to leverage the strengths of both CNNs and Mamba SSMs, creating a powerful and efficient architecture.

Impressive Performance
VCMamba’s effectiveness has been demonstrated through extensive experiments on two major computer vision tasks: ImageNet-1K classification and ADE20K semantic segmentation.
For ImageNet-1K classification, VCMamba-B, the largest variant, achieved an 82.6% top-1 accuracy. This performance surpasses PlainMamba-L3 by 0.3% while using 37% fewer parameters, and outperforms Vision GNN-B by 0.3% with a remarkable 64% fewer parameters. Even the smaller VCMamba-S model achieved 78.7% top-1 accuracy with only 10.5 million parameters, outperforming other lightweight models like ViM-Ti.
In semantic segmentation on the ADE20K dataset, VCMamba also showed strong results. VCMamba-B achieved an impressive 47.1 mIoU, exceeding EfficientFormer-L7 by 2.0 mIoU while utilizing approximately 62% fewer parameters in its backbone. These results highlight VCMamba’s ability to learn powerful representations for dense prediction tasks, which are crucial for applications like autonomous driving and medical imaging.
The VCMamba architecture represents a significant step forward in designing efficient and high-performing vision backbones. By thoughtfully integrating convolutional feature extraction with multi-directional Mamba State Space Models, it offers a scalable solution for complex visual understanding tasks.
