Unveiling the Nuances of AI-Generated Music: A New Benchmark for Spiking Neural Networks

TLDR: MuSpike is a new benchmark and evaluation framework for symbolic music generation using Spiking Neural Networks (SNNs). It systematically assesses five SNN architectures across five datasets, combining objective metrics with a large-scale human listening study. The research reveals that different SNN models have varied strengths, listener backgrounds influence perception (experts are more tolerant), and there’s a significant gap between objective statistical measures and human subjective judgment of musical quality.

Symbolic music generation, which involves creating music using discrete symbols to represent elements like melody, harmony, and rhythm, has seen significant advancements with traditional artificial neural networks. However, its exploration within the realm of biologically plausible spiking neural networks (SNNs) has been limited. SNNs, which mimic the way biological neurons communicate through time-dependent spikes, are particularly well-suited for processing temporal information with high precision. Despite their potential, a lack of standardized benchmarks and comprehensive evaluation methods has hindered their progress in music generation.

To address this critical gap, researchers have introduced MuSpike, a pioneering benchmark and evaluation framework designed specifically for symbolic music generation using SNNs. This framework offers a unified approach to systematically assess the generative capabilities of various SNN architectures.

What is MuSpike?

MuSpike is a comprehensive system that evaluates five representative SNN architectures: SNN-CNN, SNN-RNN, SNN-LSTM, SNN-GAN, and SNN-Transformer. These models are tested across five diverse and widely-used symbolic music datasets, including JSB Chorales, POP909, Lakh MIDI, EMOPIA, and XMIDI. These datasets cover a broad spectrum of musical characteristics, from tonal polyphony and pop structures to emotional and genre-varied music.

A key innovation of MuSpike is its emphasis on a holistic evaluation approach. It combines established objective metrics, which analyze statistical and structural properties of the generated music, with a large-scale human listening study. This human-centered assessment is crucial because music, as a product of human cognition, evokes complex emotional states, autobiographical memories, and cultural expectations that purely statistical metrics often miss.

The framework also introduces novel subjective metrics to capture deeper perceptual and psychological aspects of musical experience. These include evaluating musical impression, autobiographical association (whether the music reminds listeners of personal experiences), and personal preference, dimensions frequently overlooked in previous research.

Key Findings from MuSpike

The research yielded several important insights into SNN-based music generation:

  • Varied Strengths of SNN Models: Different SNN models exhibit distinct strengths across various evaluation dimensions. For instance, SNN-RNN showed high pitch diversity but sometimes produced ‘pitch overflow,’ while SNN-GAN had simpler, more repetitive pitch structures. S-Transformer generally performed best among the SNN models in subjective evaluations.

  • Influence of Musical Background: Participants with different musical backgrounds showed diverse perceptual patterns. Expert musicians, surprisingly, demonstrated greater tolerance toward AI-composed music, often rating it higher than amateur listeners. Amateurs, on the other hand, displayed a more polarized view, strongly preferring human compositions and being more critical of AI-generated pieces. Normal listeners were less sensitive to musical features, providing more moderate ratings.

  • Objective-Subjective Misalignment: A significant finding was the noticeable misalignment between objective statistical evaluations and human subjective judgments. For example, objective metrics might indicate that an SNN model successfully captures tonal consistency or rhythmic patterns, showing minimal difference from human-composed music. However, human listeners, particularly experts, often rated the same AI-generated music significantly lower in terms of perceived tonal coherence, rhythmic quality, or natural harmonic progression. This highlights the limitations of relying solely on statistical metrics and underscores the invaluable role of human perceptual judgment in assessing musical quality.

The Turing Test Results

As part of the blind listening study, a Turing test was conducted to see if participants could distinguish between human- and AI-composed music. On average, participants achieved an accuracy of 66.83% in differentiating the two. Amateur musicians were the most accurate, with an 82.85% success rate, showing high sensitivity to AI-generated compositions. Interestingly, expert musicians, while having a high overall accuracy of 78.67%, exhibited the lowest accuracy in identifying human-composed music (only 28.2%). This ‘reverse Turing bias’ suggests that experts apply stricter criteria, potentially misclassifying simpler human pieces due to high expectations for complexity.

Conclusion and Future Directions

MuSpike establishes the first systematic benchmark and comprehensive evaluation framework for SNN models in symbolic music generation. The findings emphasize the critical need to move beyond purely statistical metrics and integrate human perceptual validation and listener-centered assessment in music generation research. This work lays a solid foundation for future research into biologically plausible and cognitively grounded music generation, pushing the boundaries of what AI can achieve in creating music that truly resonates with human experience.
