TLDR: I-RA VEN-X is a new symbolic benchmark designed to evaluate the generalization and robustness of Large Language Models (LLMs) and Large Reasoning Models (LRMs) in analogical and mathematical reasoning. It extends previous benchmarks by increasing problem complexity and introducing perceptual uncertainty. The study found that LRMs significantly outperform LLMs in generalizing mathematical reasoning to more complex problems, showing much less performance degradation. However, both LRMs are considerably challenged by reasoning under uncertainty, with accuracy dropping significantly when noise factors are introduced.
Researchers have introduced a new symbolic benchmark called I-RA VEN-X, designed to rigorously evaluate how well Large Language Models (LLMs) and Large Reasoning Models (LRMs) can generalize their analogical and mathematical reasoning abilities, and how robust they are when faced with uncertainty. This new benchmark builds upon its predecessor, I-RA VEN, by significantly increasing the complexity of reasoning tasks and introducing elements of perceptual uncertainty, aiming to provide a more comprehensive assessment of advanced AI systems.
The I-RA VEN-X benchmark addresses several limitations found in earlier reasoning datasets. Previous benchmarks often featured overly simplistic problems with few operands, and their solutions were sometimes publicly available, posing a risk of data leakage during model training. Furthermore, they typically assumed perfect perception, which isn’t realistic for real-world, end-to-end AI systems.
What Makes I-RA VEN-X Different?
I-RA VEN-X enhances the evaluation of AI reasoning along several key dimensions:
- Productivity: It increases the number of operands in reasoning relations, for example, using 3×10 matrices instead of the standard 3×3, pushing models to handle longer reasoning chains.
- Systematicity: The benchmark introduces much larger dynamic ranges for operand values, requiring models to generalize across a wider spectrum of concepts.
- Robustness to Confounding Factors: It adds irrelevant attributes (like background patterns or object colors) that do not contribute to the reasoning task, forcing models to filter out noise and focus on relevant information.
- Robustness to Non-Degenerate Value Distributions: Instead of perfectly clear attribute values, I-RA VEN-X introduces variance and uncertainty in these values, simulating imperfect sensory input.
These enhancements allow I-RA VEN-X to test how well models can generalize to more complex problems and how robust their reasoning is when faced with imperfect or noisy information, moving closer to real-world challenges.
Key Findings: LRMs Outperform LLMs in Generalization, But Both Struggle with Uncertainty
The study evaluated state-of-the-art LLMs, such as GPT-4 and Llama-3 70B, and LRMs, including OpenAI o3-mini and DeepSeek R1. The results revealed significant differences in their performance:
Generalization (Productivity and Systematicity): LRMs demonstrated a clear advantage over LLMs in analogical and mathematical reasoning, especially when dealing with longer reasoning relations and wider attribute ranges in I-RA VEN-X. For instance, LRMs experienced a much smaller drop in arithmetic accuracy (from 80.5% to 63.0%) compared to LLMs (which plummeted from 59.3% to a mere 4.4%) when faced with increased complexity. This suggests that LRMs are better at identifying and applying mathematical rules across more challenging scenarios and require less extensive prompt engineering to achieve strong results.
Robustness to Uncertainty: Despite their strengths in generalization, LRMs, like LLMs, were significantly challenged when perceptual uncertainty was introduced. When noise factors, such as additional confounding attributes or smoothened attribute value distributions, were integrated into the tasks, both LRMs showed substantial drops in accuracy. In the most challenging scenarios, where both confounders and distribution smoothing were at their maximum, task accuracy for models like o3-mini and DeepSeek R1 fell sharply, nearing random chance. This indicates a significant limitation in their ability to reason effectively under probabilistic outcomes and explore multiple uncertain possibilities.

Conclusion
The I-RA VEN-X benchmark provides a valuable tool for understanding the capabilities and limitations of current AI models in abstract reasoning. While Large Reasoning Models show superior generalization and systematicity compared to Large Language Models on complex analogical and mathematical tasks, both types of models still face considerable hurdles when reasoning under conditions of uncertainty. This research highlights the ongoing need for advancements in AI to handle ambiguous and noisy information more effectively. You can read the full research paper here.
