Unifying Logic in Knowledge Graphs with a New Diffusion Model

TLDR: The research paper introduces DARK, a novel framework that unifies deductive and abductive reasoning in knowledge graphs using a masked diffusion model. By treating logical queries and conclusions as a single sequence, DARK captures their joint distribution. It features a self-reflective denoising process for iterative hypothesis refinement via deductive validation and a logic-exploration reinforcement learning approach to discover richer logical associations. Experiments show DARK achieves state-of-the-art performance on both reasoning tasks across multiple benchmarks, demonstrating the benefits of its unified approach.

Knowledge graphs are fundamental structures that organize information across the modern web, powering everything from semantic search to intelligent assistants. Within these complex networks, two primary forms of reasoning are crucial: deductive and abductive. Deductive reasoning involves drawing specific conclusions from general rules and known facts, like answering a complex query about entities that satisfy certain conditions. Abductive reasoning, on the other hand, works in reverse, generating plausible hypotheses to explain observed facts or conclusions.

Historically, these two reasoning paradigms have been studied and developed in isolation. However, they possess a clear synergistic potential: deduction can validate hypotheses generated by abduction, while abduction can uncover deeper logical patterns that enhance deductive models. Recognizing this untapped potential, a team of researchers from The Hong Kong University of Science and Technology, Beihang University, and Guangxi Normal University has introduced a novel framework called DARK.

Introducing DARK: A Unified Reasoning Framework

DARK, which stands for Deductive and Abductive Reasoning in Knowledge graphs, is a groundbreaking unified framework designed to bridge the gap between these two reasoning types. It leverages a masked diffusion model, a powerful generative AI technique, to capture the bidirectional relationship between logical queries and their conclusions. The core insight behind DARK is to treat a logical query and its corresponding conclusion as a single, unified sequence, allowing the model to learn their joint distribution and reason effectively in both directions.

The framework introduces two key innovations to achieve its unified approach:

  • Self-Reflective Denoising Process: During abductive reasoning, where the goal is to generate hypotheses, DARK incorporates a self-reflective mechanism. This process iteratively generates multiple candidate hypotheses and then uses deductive reasoning to validate and refine them against the observed conclusion. It’s akin to how humans might brainstorm explanations and then test them for consistency, ensuring the selected hypothesis is the most plausible.
  • Logic-Exploration Reinforcement Learning: To discover richer and more diverse logical associations, DARK employs a reinforcement learning approach that simultaneously masks both queries and conclusions. This encourages the model to explore novel reasoning compositions and uncover deeper structural dependencies within the knowledge graph, moving beyond simply reproducing known patterns.

How DARK Works

At its heart, DARK operates as a masked diffusion model. In a simplified view, the model first ‘corrupts’ a combined sequence of a query and its conclusion by masking tokens. Then, in a reverse, ‘denoising’ process, it iteratively reconstructs the original sequence. For abductive tasks, query tokens are masked, and the model infers them from the conclusion. For deductive tasks, conclusion tokens are masked, and the model infers them from the query.

The self-reflective aspect comes into play during the denoising steps. At regular intervals, DARK generates several potential hypotheses. For each hypothesis, it performs a deductive step to see what conclusion it would yield. By comparing these derived conclusions with the actual observed conclusion using a similarity score (like the Jaccard Index), the model selects the best-fitting hypothesis to guide its next denoising step. This iterative refinement significantly enhances the accuracy of the generated hypotheses.

The logic-exploration reinforcement learning further refines the model. Instead of starting from a fully masked state, the model begins with partially masked query-conclusion pairs. It is then rewarded based on the logical consistency of the generated pairs, encouraging it to explore a broader range of valid logical relationships and avoid simply converging on a single, high-reward solution.

Impressive Performance and Future Potential

Extensive experiments conducted on benchmark knowledge graph datasets such as DBpedia50, WN18RR, and FB15k-237 demonstrate that DARK achieves state-of-the-art performance on both deductive and abductive reasoning tasks. It consistently outperforms existing specialized methods like AbductiveKGR and significantly surpasses the capabilities of general large language models, which struggle with the structured nature and complexity of knowledge graph reasoning.

The research highlights DARK’s strong ability to handle complex logical relationships, including those involving negation and disjunction. While general large language models showed some capacity for simpler patterns, their performance declined sharply with increased complexity. DARK’s unified approach not only improves accuracy but also exhibits strong generalization across diverse reasoning scenarios.

This work represents a significant step forward in knowledge graph reasoning, offering a robust and scalable framework that leverages the strengths of diffusion models. By enabling deduction and abduction to mutually reinforce each other, DARK paves the way for more unified, interpretable, and powerful intelligent applications on the web.
