TLDR: ULTRA 3D is a new framework for efficient and high-fidelity 3D model generation. It uses a two-stage process: first, a compact VecSet representation for a coarse layout, then a novel “Part Attention” mechanism to refine details by focusing attention within specific object parts. This approach significantly speeds up 3D generation (up to 3.3x overall) without sacrificing quality, enabling high-resolution outputs.
Creating detailed 3D models has become increasingly important for various applications, from gaming and virtual reality to digital content creation and robotics. Recent advancements in using sparse voxel representations have significantly improved the quality of these 3D models, allowing for high-resolution designs with intricate geometric details. However, these existing methods often face a major hurdle: they are incredibly slow and computationally demanding, primarily due to the complex attention mechanisms used in their two-stage generation processes.
A new framework called ULTRA 3D aims to solve this efficiency problem without compromising the high quality of 3D generation. Developed by researchers from Nanyang Technological University, Math Magic, Tsinghua University, Beijing Normal University, and Westlake University, ULTRA 3D introduces innovative approaches to accelerate the process of creating detailed 3D models from images.
Addressing the Efficiency Challenge
Current 3D generation pipelines typically involve two main stages: first, predicting the coordinates of active voxels (tiny 3D pixels that define the object’s shape), and then generating detailed features for each of these voxels. Both stages often rely on Diffusion Transformers (DiT), which, while powerful, become computationally expensive as the resolution increases. The number of ‘tokens’ (data units) processed can grow significantly, leading to a quadratic increase in the cost of attention computations.
ULTRA 3D tackles this by rethinking the first stage. Instead of directly predicting tens of thousands of voxel coordinates, it first generates a coarse object layout using a compact representation called VecSet. VecSet encodes a 3D object into a small set of latent tokens, making the initial generation much faster—reducing generation time from several minutes to just a few seconds for coarse models. This coarse mesh is then converted into sparse voxels, providing a solid foundation for the next stage.
Introducing Part Attention for Finer Details
The second stage, where per-voxel latent features are refined, is typically the biggest bottleneck. Existing methods use ‘full attention,’ meaning every voxel interacts with every other voxel, which is inefficient for refining local details when the overall structure is already established. ULTRA 3D introduces a novel mechanism called Part Attention to overcome this.
Part Attention is a geometry-aware, localized attention mechanism. Instead of global interactions, it restricts attention computation within semantically consistent part regions of the object. For example, when refining a car model, the attention for a wheel part would primarily focus on other parts of the wheel, rather than the entire car body. This design preserves structural continuity while avoiding unnecessary computations across unrelated regions. This intelligent approach leads to a significant speed-up, achieving up to a 6.7 times acceleration in latent generation compared to full attention, without sacrificing quality.
Unlike traditional ‘window attention’ used in other models, which divides space into fixed regions that often misalign with an object’s semantic parts, Part Attention dynamically groups tokens based on the object’s actual parts and geometric layout. This ensures consistency and high-quality output, as demonstrated in experiments where Part Attention maintained quality comparable to full global attention, while fixed window attention led to degraded geometry.
A Scalable Part Annotation Pipeline
To enable Part Attention, ULTRA 3D requires part-level annotations for 3D models. Since large-scale datasets with such annotations are scarce, the researchers developed an efficient and scalable part annotation pipeline. This pipeline uses an existing model called PartField to convert raw mesh data into sparse voxels with part annotations. It also includes filtering strategies to ensure high data quality, processing each mesh in just a few seconds, making it practical for annotating millions of 3D assets.

Performance and Impact
Extensive experiments show that ULTRA 3D significantly accelerates the 3D generation pipeline by 3.3 times overall, without compromising the final quality. In user studies, ULTRA 3D consistently produced higher fidelity and richer surface details compared to prior methods, with 68.5% of participants preferring its results over existing state-of-the-art models. Users also strongly favored Part Attention over other attention mechanisms, confirming its effectiveness in maintaining geometric continuity and semantic alignment.
By combining the efficiency of VecSet for coarse object layouts with the precision and speed of Part Attention for fine-grained details, ULTRA 3D makes high-resolution 3D generation more practical and accessible. This advancement opens new possibilities for creating detailed 3D content efficiently across various industries. You can find more details about this research in the paper available at arXiv.
