The Loong Project: Advancing AI Reasoning with Scalable Synthetic Data and Verification

TLDR: The Loong Project introduces an open-source framework to enhance Large Language Models’ reasoning capabilities across diverse domains. It tackles the scarcity of high-quality, verifiable datasets by using a curated seed dataset (LOONG BENCH) and a modular synthetic data generation environment (LOONG ENV). The framework generates verifiable question-answer-code triples, enabling scalable reinforcement learning where LLM-generated solutions are compared against code-executed answers. This approach improves model performance in complex reasoning tasks, especially in domains beyond traditional mathematics and programming.

Large Language Models (LLMs) have shown remarkable progress in their ability to reason, especially when trained with methods that allow for verifiable rewards, such as in mathematics and programming. These fields benefit from easily verifiable answers, making it straightforward to assess an LLM’s performance and provide accurate feedback. However, extending this success to other complex reasoning domains like logic, physics, or finance has been a significant challenge. The main hurdles are the lack of high-quality, verifiable datasets and the high cost of human supervision needed to create them.

Introducing the Loong Project

To address these challenges, researchers have introduced the Loong Project, an innovative open-source framework designed for scalable synthetic data generation and verification across a wide array of reasoning-intensive domains. This project aims to enable LLMs to acquire domain-specific reasoning patterns even where abundant, verified datasets are scarce.

The Loong Project is built around two core components:

  • LOONG BENCH: A carefully curated seed dataset comprising 8,729 human-vetted examples across 12 diverse domains, including Advanced Mathematics, Chemistry, Logic, Finance, and more. Each example in LOONG BENCH is paired with executable code and rich metadata, ensuring high quality and verifiability.

  • LOONG ENV: A flexible and modular environment for generating synthetic data. It supports various prompting strategies to produce new question-answer-code triples, effectively expanding the training data in a controllable and verifiable manner.

How the Loong Framework Works

The framework operates through an agent-environment loop. First, a generator uses the seed datasets from LOONG BENCH to produce synthetic data points, including automatically generated questions and corresponding executable code. This code is then executed within LOONG ENV to yield synthetic answers. Next, a trainable LLM-based agent is prompted to solve these synthetic questions by generating natural language Chain-of-Thought (CoT) responses. Finally, a verifier compares the agent’s CoT-derived answer to the code-generated answer. This setup allows for large-scale reinforcement learning with minimal human supervision, maintaining semantic correctness through automated verification.

The project emphasizes that an LLM equipped with a code interpreter is often more reliable for complex tasks than one relying solely on natural language reasoning, mirroring how many scientific disciplines operate.

Key Contributions and Findings

The Loong Project makes several significant contributions:

  • It provides LOONG BENCH, a high-quality seed dataset with executable code and verified answers across 12 domains.

  • It develops LOONG ENV, a synthetic data generation environment supporting multiple strategies for diverse and verifiable question-answer pairs.

  • It benchmarks LOONG BENCH across a broad suite of LLMs, both open-source and proprietary, to evaluate domain coverage and identify performance bottlenecks.

  • It conducts a detailed analysis of the synthetic data generated by LOONG ENV, examining its correctness, difficulty, and diversity.

Benchmarking results revealed a wide range of difficulty across the 12 domains. Reasoning-optimized models like o3-mini and DeepSeek-r1 consistently outperformed others, highlighting the need for structured, multi-step reasoning. Open-source models, while competitive in some areas, showed a performance gap in highly reasoning-intensive domains like Game and Logic.

When generating synthetic data with LOONG ENV, researchers explored three strategies: Few-shot prompting, Self-Instruct, and Evol-Instruct. Few-shot prompting generally yielded the highest pass rates, indicating stable generation. Evol-Instruct, despite higher rejection and execution failure rates, proved valuable for synthesizing more diverse and challenging reasoning tasks, effectively capturing edge cases and deeper reasoning patterns. This suggests a trade-off between generation reliability and the ability to create more complex, beneficial training examples.

The analysis also showed that Evol-Instruct generated questions that, while semantically similar to the seed data, were substantially harder for models to solve. This indicates that Evol-Instruct successfully increases reasoning complexity without altering the core meaning of the problems.

Future Directions

The Loong Project lays a strong foundation for future research. A key direction is to leverage LOONG ENV to support Reinforcement Learning from Verified Rewards (RLVR), where the CoT-generating agent receives positive rewards only when its final answer is semantically verified. Further plans include extending LOONG ENV with tool-augmented generation and formal abstraction, and scaling LOONG BENCH to cover multilingual and multimodal tasks.
