TLDR: TATTOO is a novel Process Reward Model (PRM) designed to enhance the reasoning capabilities of Large Reasoning Models (LRMs) on complex tabular data. Unlike existing PRMs that struggle with table-specific operations like data retrieval and schema interaction, TATTOO provides explicit table-grounded supervision and integrates external tools (e.g., Python code) for precise step-by-step verification. Through a dual-stage training paradigm involving supervised fine-tuning and reinforcement learning with reward shaping, TATTOO significantly improves LRM performance on various tabular reasoning benchmarks, outperforming larger PRM baselines with greater parameter efficiency and strong generalizability across different test-time scaling strategies.
Large Reasoning Models (LRMs) have become incredibly powerful, excelling at a wide range of tasks. However, when it comes to understanding and reasoning with complex tabular data – like spreadsheets or database tables – they often hit a wall. This isn’t just about simple lookups; it involves intricate numerical analysis, fact-checking, and data interpretation that requires a deep understanding of how information is structured in rows and columns.
A key challenge lies in verifying the step-by-step thought processes of these LRMs, especially during what’s called ‘test-time scaling’ (TTS), where models generate multiple reasoning paths to find the best answer. Existing verification systems, known as Process Reward Models (PRMs), have been effective for text-based reasoning, but they struggle significantly with table-specific operations. Our research, detailed in the paper TATTOO: TOOL-GROUNDED THINKING PRM FOR TEST-TIME SCALING IN TABULAR REASONING, identifies these limitations and proposes a novel solution.
Why Current AI Struggles with Tables
Through extensive analysis, we found that traditional PRMs falter in two critical areas when dealing with tables:
- Table Retrieval: PRMs often fail to accurately assess whether an LRM has extracted the correct and relevant parts of a table for a given query. They can’t tell if the LRM is looking at the right data.
- Schema Interaction: Tables have a semi-structured nature, with column headers defining relationships. LRMs sometimes overlook these long-range dependencies, leading to errors. Current PRMs, being very localized in their checks, miss these subtle misinterpretations.
Introducing TATTOO: A Table-Grounding and Tool-Integrated Verifier
To overcome these hurdles, we developed TATTOO (Table Thinking PRM with Tool integration abilities). TATTOO is designed from the ground up to provide more reliable and precise supervision for tabular reasoning. It does this by:
- Table-Aware Rewards: TATTOO explicitly differentiates between reasoning steps that involve table operations (like retrieving data or interacting with the table’s structure) and those that are purely ‘inner-thinking’ or text-based. This allows for targeted and accurate reward signals.
- Tool Integration: A major innovation is TATTOO’s ability to leverage external tools. Imagine an AI model that can write and execute Python code for calculations or use specialized data lookup utilities to verify its steps. TATTOO does exactly this, incorporating tool invocations and their results directly into its verification process. This makes its judgments far more robust than text-only verifiers.
How TATTOO is Built and Trained
Building TATTOO involved a scalable data curation pipeline that generated over 60,000 high-quality step-level annotations. This data integrates expert verification rationales with actual tool-based executions. TATTOO is then trained using a dual-stage approach:
- Supervised Fine-Tuning (SFT): Initially, the model learns to identify correct sub-table regions, dynamically incorporate relevant table prefixes into its reasoning, and generate verification rationales that include tool-use patterns.
- Reinforcement Learning (RL) with Reward Shaping: Following SFT, TATTOO undergoes reinforcement learning. This stage refines its verification process, encouraging more effective tool manipulation and faithful reasoning. A specially designed reward shaping scheme helps align the model with table-based verification, ensuring it learns to use tools optimally.

Impressive Results and Efficiency
We conducted extensive evaluations across five challenging tabular reasoning benchmarks, covering tasks like table-based question answering, numerical reasoning, fact-checking, and data analysis. The results were striking:
- TATTOO, with only 8 billion parameters, significantly improved downstream LRM policies by 30.9% at inference time.
- It consistently outperformed strong PRM baselines, including models with up to 72 billion parameters, demonstrating remarkable parameter efficiency (up to 9x more efficient).
- TATTOO showed strong generalizability across diverse test-time scaling strategies, such as Beam Search and Diverse Verifier Tree Search, continuing to improve performance even as the number of generated solutions increased, where other PRMs often plateaued.
These findings underscore the critical importance of table-grounded reward supervision and tool integration for advancing AI’s capabilities in structured reasoning tasks. TATTOO represents a significant step forward in enabling AI models to truly master complex tabular data.
