SynC: A New Approach to Clean Up AI-Generated Image Datasets

TLDR: SynC is a novel framework designed to refine synthetic image-caption datasets for Zero-shot Image Captioning (ZIC). It addresses semantic misalignments in images generated by text-to-image models by reassigning captions to the most semantically aligned images already in the synthetic image pool. This is achieved through a one-to-many mapping strategy and a cycle-consistency-inspired alignment scorer. SynC significantly improves ZIC model performance across various benchmarks and offers a practical solution for curating high-quality synthetic data.

In the rapidly evolving field of artificial intelligence, Zero-shot Image Captioning (ZIC) has emerged as a crucial area of research. This technology aims to generate descriptions for images without needing to see examples of those specific images during training. A common approach to achieve this involves using synthetic datasets, which are created by powerful text-to-image (T2I) models like Stable Diffusion. These models can generate images from text descriptions, effectively creating image-caption pairs without the laborious and expensive process of manual annotation.

However, this method comes with a significant challenge: the synthetic images generated by T2I models often suffer from semantic misalignments. This means the image might not perfectly match its corresponding input caption. For instance, a caption describing “a cake in the shape of a train” might result in an image of a regular cake, or an image missing specified objects or having incorrect attributes. This leads to noisy synthetic image-caption pairs, which can hinder the training of ZIC models.

Existing methods for cleaning up datasets, known as dataset pruning techniques, are largely designed to remove noisy text from web-crawled data. These techniques are not well-suited for synthetic datasets, where the captions are typically well-formed, but the images themselves are the source of the noise due to generation inaccuracies. Applying these traditional methods can even degrade performance and incur significant computational costs, as they often rely on powerful pre-trained models that might not address image-based misalignments effectively.

To tackle this unique problem, researchers have introduced SynC, a novel framework specifically designed to refine synthetic image-caption datasets for ZIC. SynC takes a different approach than conventional filtering or regeneration. Instead, it focuses on intelligently reassigning captions to the most semantically aligned images that are already present within the synthetic image pool.

The SynC framework operates with two key components. First, it employs a “one-to-many mapping” strategy. This means that for each caption, instead of being stuck with its initially generated image, SynC retrieves multiple relevant candidate images from the entire pre-generated synthetic image pool. This process uses a text-to-image retrieval mechanism, where the caption acts as a query to find the best visual matches.

Second, SynC utilizes a sophisticated “cycle-consistency-inspired alignment scorer.” After identifying multiple candidate images for a caption, this scorer selects the best image by verifying its ability to retrieve the original caption (or a semantically similar one) via an image-to-text retrieval process. This dual cross-modal retrieval (text-to-image for selection and image-to-text for scoring) ensures a high degree of semantic alignment between the chosen image and its caption. By retaining only the newly assigned synthetic image pairs with high alignment scores, SynC effectively refines noisy datasets.

Despite its conceptual simplicity, SynC has demonstrated consistent and significant performance improvements across various ZIC models on standard benchmarks such as MS-COCO, Flickr30k, and NoCaps. It has achieved state-of-the-art results in several scenarios, proving its effectiveness in enhancing ZIC model training. Furthermore, SynC improves generalization capabilities in cross-domain and out-of-domain settings, and it is computationally efficient compared to many existing web data pruning methods.
