Smart Data Collection Powers New Parametric Guitar Amp Models

TLDR: PANAMA is an open-source framework that uses active learning with an LSTM ensemble to efficiently train parametric guitar amp models. It identifies the most informative amp knob settings to minimize data collection. With only 75 data points, PANAMA’s models achieve perceptual quality comparable to leading non-parametric amp modelers like NAM, making parametric amp modeling more accessible and practical for creating virtual amps with full knob control.

Guitarists and music producers often seek to replicate the unique sounds of various guitar amplifiers. Traditionally, this has involved either owning many physical amps or using complex digital simulations. Recent advancements in artificial intelligence, specifically neural networks, have opened new doors for creating virtual amplifier models. These models can learn the intricate sound transformations of an amp directly from data, allowing them to be used as plugins in digital audio workstations (DAWs) or on dedicated modeling pedals.

There are two main types of these AI-driven amp models: non-parametric models, often called “captures,” which are snapshots of an amp at a specific knob setting, and parametric models, which allow users to freely adjust virtual knobs during playback, just like a real amp. While non-parametric models like the popular open-source Neural Amp Modeler (NAM) are widely used, open-source parametric models with full knob control have been a significant challenge due to the extensive data collection required. Imagine having to record the amp’s sound for every possible combination of knob settings – the number of measurements would be astronomical!

This is where a new framework called PANAMA (PArametric Neural Amp Modeling with Active learning) steps in. Developed by researchers at ETH Zurich, PANAMA introduces an innovative active learning approach to overcome the data collection hurdle. Active learning is a smart training method that reduces the amount of data needed by intelligently selecting the most informative data points to learn from. Instead of randomly collecting samples, PANAMA actively determines which amp knob settings will provide the most valuable information to the model.

The core of PANAMA’s active learning strategy involves an ensemble of LSTM (Long Short-Term Memory) models. These models are trained independently, and their “disagreement” on a particular amp setting is used as a guide. If the models disagree significantly on how an amp should sound at a certain setting, it indicates high uncertainty in that area of the sound space. PANAMA then uses gradient-based optimization to find these “most informative” knob settings, which are then recorded from a real or simulated amp and added to the training data. This iterative process ensures that the model learns efficiently, focusing on the settings that will improve its understanding the most.

The researchers conducted MUSHRA listening tests to evaluate PANAMA’s performance. These tests revealed that with just 75 actively selected data points, PANAMA’s parametric models could match the perceptual quality of NAM, the leading open-source non-parametric amp modeler. This is a remarkable achievement, as it means users can get a high-quality, fully controllable virtual amp with significantly less data collection effort than traditional methods. The study also explored different neural network architectures, finding that a combination of LSTM for the active learning ensemble and WaveNet for the final model provided the best balance of training speed and sound quality.
