RedOne 2.0: Optimizing Language Models for the Dynamic World of Social Media

TLDR: RedOne 2.0 introduces a novel three-stage, reinforcement learning-prioritized post-training framework for large language models (LLMs) tailored for social networking services (SNS). This method addresses challenges like rapidly evolving slang and diverse content by progressively aligning the model, selectively fine-tuning weaknesses, and refining performance with SNS-centric rewards. It achieves superior data efficiency and stability, allowing smaller models to outperform larger baselines and demonstrating significant improvements in both general and domain-specific tasks, including successful real-world application in personalized post title generation.

Large Language Models (LLMs) have made incredible strides in understanding and generating human language, but deploying them effectively in the fast-paced and ever-evolving world of Social Networking Services (SNS) presents unique challenges. Platforms like Instagram, TikTok, or X (formerly Twitter) are characterized by rapidly shifting trends, evolving slang, diverse cultural expressions, and a wide array of tasks from content moderation to personalized recommendations. General-purpose LLMs often struggle to keep up, leading to a trade-off where improvements in specific areas can cause them to ‘forget’ broader capabilities.

Traditional methods, often relying heavily on Supervised Fine-Tuning (SFT), can specialize models but frequently result in a ‘seesaw’ effect. This means that while a model might get better at in-domain tasks, its robustness and generalization to new or slightly different situations can suffer, especially for smaller models prone to catastrophic forgetting.

Introducing RedOne 2.0: A Progressive Approach

To tackle these issues, researchers have introduced RedOne 2.0, an LLM specifically designed for SNS environments. It employs a progressive, Reinforcement Learning (RL)-prioritized post-training method aimed at rapid and stable adaptation. This innovative pipeline consists of three distinct stages, each building upon the last to refine the model’s capabilities without sacrificing its general understanding.

The first stage is Exploratory Learning. Here, the model is exposed to a carefully curated collection of SNS data. This initial immersion helps the model align with the unique characteristics of social media language and interactions. Crucially, this stage also helps identify specific areas where the model is weak or unfamiliar, setting the groundwork for targeted improvements. Unlike simpler reward systems, RedOne 2.0 uses task-specific reward functions, such as exact match for clear-cut answers, metrics-based rewards for open-ended tasks like translation, sandbox simulations for code generation, and pattern matching for format adherence.

Following this, the Targeted Fine-Tuning stage addresses the weaknesses identified earlier. This involves selectively applying SFT to the diagnosed gaps. To prevent the model from forgetting its broader knowledge, a small fraction of general-purpose data is mixed in during this phase. This general data often comes with ‘soft labels’ – responses generated by a previous version of the model – which helps maintain general capabilities while focusing on domain-specific improvements.

Finally, the Refinement Learning stage consolidates all the improvements. Reinforcement Learning is re-applied using SNS-centric signals to further fine-tune the model’s behavior, harmonize trade-offs across different tasks, and stabilize its performance. This stage often increases the proportion of rationale-rich samples, further enhancing the model’s reasoning abilities.

Impressive Results and Real-World Impact

RedOne 2.0 has demonstrated remarkable performance. A 4-billion parameter version of RedOne 2.0 achieved an average improvement of 2.41 over a 7-billion parameter baseline, showcasing that strong performance is attainable even at more compact scales. It also achieved an 8.74 performance lift from its base model, requiring less than half the data compared to its SFT-centric predecessor, RedOne. This highlights its superior data efficiency and stability.

The framework’s effectiveness extends to real-world applications. When deployed on a large social networking platform to personalize and re-create post titles in real-time, RedOne 2.0 showed significant gains. Advertiser Value increased by 0.43%, while content quality metrics improved substantially: vague titles decreased by 11.9%, and practical, authentic, and interactive titles increased by 7.1%, 12.9%, and 25.8% respectively. These results underscore its ability to enhance user experience and deliver measurable business value.

RedOne 2.0’s progressive, RL-prioritized approach effectively avoids the ‘seesaw’ effect common in SFT-heavy pipelines, ensuring consistent improvements in both general and SNS-specific abilities. It also outperforms traditional task-specific fine-tuning by leveraging inter-task relationships within a unified training framework, leading to more comprehensive capabilities. Overall, RedOne 2.0 establishes a competitive, cost-effective, and scalable solution for deploying LLMs in the dynamic and diverse landscape of social networking services, advancing capability without sacrificing robustness or general usability.
