RACE Attention: A Linear Scaling Breakthrough for Long Context AI Models

TLDR: RACE Attention is a novel attention mechanism that replaces Softmax similarity with a sharpened angular similarity, using randomized projections and soft Locality-Sensitive Hashing (LSH). This approach achieves linear time complexity in sequence length and embedding dimension, enabling processing of ‘outrageously long’ contexts up to 75 million tokens on a CPU and 12 million tokens on a GPU, far exceeding the limits of traditional Softmax Attention while maintaining or improving accuracy.

The world of artificial intelligence, particularly in areas like language processing and computer vision, heavily relies on a fundamental component called ‘Attention’. This mechanism, central to Transformer models, allows AI to focus on relevant parts of an input sequence when making predictions. However, the traditional Softmax Attention, while powerful, faces a significant hurdle: its computational cost grows quadratically with the length of the input sequence. This means as AI models attempt to understand longer texts, complex code, or extended audio/video, the processing time and memory requirements skyrocket, making it impractical for ‘outrageously long context windows’.

Imagine trying to process a document millions of words long. Current state-of-the-art implementations like FlashAttention, even with highly optimized GPU kernels, struggle beyond approximately 4 million tokens on powerful hardware like an NVIDIA GH200 GPU. This quadratic scaling effectively limits the ambition of AI models to handle truly vast amounts of information in a single pass.

A new research paper, titled Replacing Softmax Similarity with a Sharpened Angular Similarity: Theory and Practice of Scaling To Billion-Context Attention, introduces an innovative solution called RACE Attention. Developed by Sahil Joshi, Agniva Chowdhury, Amar Kanakamedala, Ekam Singh, Evan Tu, and Anshumali Shrivastava, RACE Attention offers a kernel-inspired alternative that dramatically changes the scaling landscape, making it linear in both sequence length and embedding dimension.

How RACE Attention Works

At its core, RACE Attention rethinks how ‘similarity’ between different parts of an input is calculated. Instead of the exponential kernel used in Softmax, it employs a ‘sharpened angular (cosine) similarity’. This angular similarity, based on the angle between data points, is then combined with randomized projections and a technique called soft Locality-Sensitive Hashing (LSH). The magic here is that RACE Attention avoids creating the massive, full attention matrix that Softmax Attention requires. Instead, it efficiently approximates the attention outputs by sketching the necessary statistics, allowing it to process information much more efficiently.

The concept of ‘sharpening’ the angular kernel is crucial. Just as the exponential function in Softmax amplifies small differences, RACE Attention uses a sharpening parameter (gamma) to make its angular kernel behave similarly, ensuring it can still sharply discriminate between highly similar items. The LSH component then groups similar items into ‘buckets’, and queries interact only with the summaries of these buckets, rather than every single item in the entire sequence. This significantly reduces the computational burden.

Unprecedented Scaling and Performance

The practical implications of RACE Attention are profound. In rigorous tests, it demonstrated the ability to process up to 12 million tokens during a single forward-backward pass on an NVIDIA GH200 GPU and an astonishing 75 million tokens on an Intel Xeon Gold 5220R CPU. These figures are well beyond the practical limits of current state-of-the-art attention implementations, which often hit memory or time barriers much earlier.

For instance, at a context length of 33 million tokens, RACE Attention on a CPU was found to be over 10,000 times faster than FlashAttention. On GPUs, at around 4 million tokens, RACE Attention was approximately 5,000 times faster. This highlights a critical finding from the paper: at very large sequence lengths, a fundamentally more efficient algorithm like RACE Attention, even running on less powerful hardware (like a CPU), can significantly outperform a highly optimized but quadratically scaling algorithm (like FlashAttention) on high-end GPUs.

Accuracy and Practicality

Beyond its impressive speed and scalability, RACE Attention maintains or even surpasses the accuracy of strong baselines across various tasks, including language modeling, masked language modeling, and text/image classification. It’s designed as a ‘drop-in replacement’ for Softmax Attention, meaning it can be easily integrated into existing Transformer architectures.

The researchers also made RACE Attention ‘trainable’ by using soft assignments to hash buckets, ensuring differentiability for end-to-end learning. It supports both causal (autoregressive) and non-causal (bidirectional) pre-training on both CPUs and GPUs, further broadening its applicability.
