ProtoVQA: Enhancing Visual Question Answering with Transparent Explanations

TLDR: ProtoVQA is a novel framework for Visual Question Answering (VQA) that provides both accurate answers and human-understandable explanations. It achieves this by learning question-aware prototypes that link answers to specific image regions and using a spatially constrained matching strategy. The framework introduces the Visual–Linguistic Alignment Score (VLAS) to evaluate explanation quality, showing significant improvements in interpretability while maintaining competitive accuracy on VQA benchmarks. ProtoVQA aims to make VQA systems more transparent and trustworthy, especially for critical applications.

Visual Question Answering (VQA) systems are becoming increasingly common, from general visual understanding to critical applications like medical imaging and autonomous driving. In these sensitive areas, it’s not enough for a model to just give a correct answer; it also needs to provide explanations that humans can easily understand and trust. Current advanced VQA models often act like ‘black boxes,’ making it hard to see how they arrive at their conclusions or to verify their reliability.

Traditional methods for explaining VQA decisions, such as visualizing attention maps, often don’t truly reflect the model’s internal thought process. This is where prototype-based modeling offers a promising alternative. These methods ground predictions in meaningful visual regions, making the reasoning more transparent. However, applying this to VQA, which involves both visual and language understanding, presents unique challenges, especially in bridging the gap between visual evidence and language queries.

Introducing ProtoVQA: A Framework for Explainable VQA

To address these challenges, researchers have developed ProtoVQA, a new framework designed to provide both accurate answers and clear, fine-grained explanations. ProtoVQA is built on three core ideas:

  • It learns ‘question-aware prototypes’ that act as reasoning anchors, directly linking answers to specific, discriminative regions within an image.
  • It uses a ‘spatially constrained matching’ technique to ensure that the visual evidence selected is coherent and relevant to the question.
  • It supports both answering questions and ‘grounding’ tasks (identifying specific regions) through a single, shared prototype backbone.

How ProtoVQA Works

At its heart, ProtoVQA processes both images and questions. It uses a vision transformer (DeiT) to extract features from image patches and a language model (DeBERTa) to understand the question. The key innovation lies in how it creates and uses prototypes. ProtoVQA generates prototypes that are specifically tailored to the question being asked. These prototypes are like learned semantic concepts, such as an object part or a texture, but they are dynamically shaped by the question’s context.

Once these question-aware prototypes are formed, ProtoVQA employs a ‘greedy matching’ algorithm. This algorithm intelligently matches these prototypes to relevant image patches. It’s not just about finding the most similar patch; it also considers spatial constraints, ensuring that the selected patches form a coherent visual region. This process makes the model’s reasoning transparent, as you can see exactly which parts of the image contributed to the answer.

For answering, ProtoVQA handles two types of responses: Type 1 for visual grounding, where it provides precise coordinate-based answers, and Type 2 for descriptive questions, where it selects from textual answer candidates. In both cases, the matched visual evidence is combined with the answer features for a final prediction.

Evaluating Explanation Quality with VLAS

A crucial aspect of ProtoVQA is its focus on explanation quality. Traditional evaluation metrics, like Intersection-over-Union (IoU), are often designed for object detection and can be misleading when assessing explanations. They might penalize valid but partially overlapping evidence or be overly sensitive to annotation scales.

To overcome this, ProtoVQA introduces the Visual–Linguistic Alignment Score (VLAS). VLAS is an interpretability-focused metric that directly measures how well the model’s highlighted regions align semantically with the ground-truth evidence. It assesses whether an explanation is ‘acceptable’ rather than just measuring pixel overlap, providing a more robust and human-centric evaluation of alignment.

Performance and Interpretability

Experiments on the Visual7W dataset show that ProtoVQA achieves competitive accuracy compared to other state-of-the-art VQA models. More importantly, it significantly outperforms baseline methods in terms of VLAS, demonstrating a much stronger visual-linguistic alignment. This means ProtoVQA not only answers correctly but also provides explanations that are genuinely faithful and aligned with human understanding.

Qualitative examples further illustrate this. When asked about a telephone, a boat, a giraffe’s ear, or a flower tub, ProtoVQA consistently highlights the precise, semantically relevant regions in the image that justify its answer. This fine-grained, part-level reasoning is a testament to its interpretability.

Future Directions and Applications

ProtoVQA represents a significant step towards VQA systems that are both high-performing and comprehensively explainable. While the current framework shows promising results, future work could explore optimizing training objectives to balance accuracy and transparency, adapting the framework to specialized domains like medical imaging, and extending it to work with generative VQA models powered by large language models.

The potential applications for interpretable VQA are vast, including media forensics (detecting manipulated videos), transportation (predicting pavement conditions), human-AI interaction (building trustworthy assistants), and even creative fields like music performance understanding.
