Policy Optimization for Resilient Decision-Making in Uncertain Environments

Decision-making systems powered by Artificial Intelligence (AI) are becoming increasingly common in our daily lives, from self-driving cars to healthcare applications. A significant challenge in developing these systems, particularly in reinforcement learning (RL), is ensuring they perform reliably even when the environment changes unexpectedly. This problem, known as ‘distribution shift’ or the ‘sim-to-real gap,’ occurs when the conditions during training differ from those during real-world deployment. For instance, a robot trained in a simulated factory might encounter unforeseen variations in a real factory, leading to performance degradation.

Understanding the Challenge: Reinforcement Learning in Unpredictable Environments

To tackle this, researchers often turn to Robust Markov Decision Processes (RMDPs). RMDPs are designed to optimize an agent’s performance against the worst-case scenario of uncertain environmental dynamics. While traditional RL focuses on finding the best actions in a known environment, RMDPs aim for policies that are resilient to variations in how the environment behaves. Two main types of RMDPs are Distributionally Robust Markov Decision Processes (DRMDPs), which define a set of possible uncertain transitions, and Robust Regularized Markov Decision Processes (RRMDPs), which penalize deviations from a known nominal transition.

However, existing robust RL methods, often based on ‘value iteration’ (calculating the value of states and actions), face limitations. They struggle with environments that have very large or continuous action spaces, as finding the ‘greedy’ best action becomes computationally difficult. Moreover, these methods often lead to deterministic policies, which might not be ideal for exploration or for scenarios requiring flexible, stochastic behavior.

Introducing DR-RPO: A New Approach to Robust Policy Learning

A team of researchers from Cornell University, University of Science and Technology of China, and Duke University has introduced a novel algorithm called Distributionally Robust Regularized Policy Optimization (DR-RPO). This algorithm addresses the critical question of whether provably efficient policy optimization methods can be designed for online RMDPs, especially when dealing with large state-action spaces using linear function approximation.

DR-RPO is a model-free online policy optimization method that learns robust policies with strong theoretical guarantees. It’s designed to handle environments where the agent has limited interaction, making sample efficiency and exploration crucial. The algorithm’s core innovation lies in its ‘policy regularization,’ which ensures that the learned policies remain close to a predefined ‘reference policy.’ This not only makes the optimization more manageable within the ‘softmax policy class’ (allowing for stochastic actions) but also yields RMDP variants that are constrained in both environmental transitions and the agent’s policies.

How DR-RPO Works: Key Mechanisms

To scale to complex environments with many states and actions, DR-RPO adopts a ‘d-rectangular linear MDP formulation’ combined with ‘linear function approximation.’ This allows the algorithm to represent complex value functions and policies using a simpler, linear model. For effective exploration, DR-RPO incorporates an ‘Upper Confidence Bound (UCB)’ bonus. This bonus encourages the agent to try out less-visited state-action pairs, ensuring it gathers enough information to learn truly robust policies.

The algorithm iteratively refines its understanding of the environment and its policy. It starts with an initial policy, collects data by interacting with the environment, and then uses this data to update its estimates of how good different actions are (Q-functions). Crucially, it updates its policy using a softmax rule that balances maximizing rewards with staying close to the reference policy, a feature particularly useful for safety-critical applications or when fine-tuning existing policies.

Real-World Impact and Performance

The theoretical analysis of DR-RPO demonstrates that policy optimization can achieve polynomial suboptimality bounds and sample efficiency in robust RL, matching the performance of traditional value-based approaches. This means DR-RPO can learn effective robust policies without requiring an excessive amount of interaction with the environment.

Empirical results further corroborate these theoretical findings. The algorithm was tested on diverse domains, including a simulated off-dynamics linear MDP and the American Put Option problem. In these experiments, DR-RPO consistently showed superior robustness compared to non-robust baselines like LSVI-UCB, OPPO, and Optimistic NPG. It also performed comparably to or even slightly better than DR-LSVI-UCB, a robust value-iteration counterpart. The ability of DR-RPO to significantly outperform the uniform reference policy indicates its strong policy optimization capabilities.
