New Framework Enhances Factual Accuracy in Large Language Models by Suppressing Hallucinations

TLDR: DSCC-HS is a novel, proactive framework designed to suppress hallucinations in Large Language Models (LLMs) during text generation. Inspired by dual-process cognitive theory, it uses two small proxy models—a Factual Alignment Proxy (FAP) and a Hallucination Detection Proxy (HDP)—trained to represent factual and hallucinatory content, respectively. During inference, these proxies dynamically steer a larger target LLM by injecting a real-time ‘steering vector’ to guide it towards factual consistency and away from errors, without modifying the target model’s parameters. Experiments on TruthfulQA and BioGEN benchmarks show DSCC-HS significantly improves factual accuracy and reduces hallucination compared to existing methods.

Large Language Models (LLMs) like GPT-4 and LLaMA 2 have brought about incredible advancements in artificial intelligence, showing remarkable abilities across many language tasks. However, a significant challenge persists: hallucination. This is when LLMs generate information that sounds believable but is factually incorrect or nonsensical, undermining their reliability, especially in critical fields like medicine, finance, and law.

Current methods to combat hallucination often fall short. Retrieval-Augmented Generation (RAG) tries to ground models with external knowledge but can struggle to use that information correctly. Post-hoc verification, which corrects errors after generation, is reactive and inefficient, failing to address the root cause of hallucination within the generative process itself. This highlights a clear need for a proactive framework that can ensure factual consistency from the very beginning.

Introducing DSCC-HS: A Proactive Solution

Inspired by Nobel laureate Daniel Kahneman’s dual-process cognitive theory, which distinguishes between fast, intuitive thinking (System 1) and slow, deliberate thinking (System 2), researchers have developed the Dynamic Self-reinforcing Calibration for Hallucination Suppression (DSCC-HS). This innovative framework intervenes directly during the model’s generation process to prevent hallucinations.

DSCC-HS operates through a two-phase mechanism:

Phase 1: Training Specialized Proxy Models

During the training phase, a smaller, compact proxy model is iteratively refined into two distinct roles: a Factual Alignment Proxy (FAP) and a Hallucination Detection Proxy (HDP). Think of the FAP as a guide that learns what is factually correct, and the HDP as a detector that learns to identify what is likely to be a hallucination. This training uses a technique called contrastive logit-space optimization, along with augmented data and efficient LoRA adaptation, to teach these proxies to represent opposing directions in the model’s internal understanding – one for factual accuracy and one for hallucinatory content.

The process starts by training the HDP to specialize in generating untruthful content, effectively anchoring it in the “hallucinatory” direction. Once trained, the HDP is frozen. Then, the FAP is iteratively refined over several rounds. In each round, the FAP learns to diverge from the base model’s output in a way that is opposite to the HDP’s output. This pushes the FAP towards a “factual” understanding while pulling it away from the “hallucinatory” tendencies defined by the HDP. This iterative training is highly efficient, updating only a small fraction of the model’s parameters.

Phase 2: Dynamic Steering During Generation

During inference, when a large target model (like Qwen3-8B-Instruct) is generating text, these two frozen proxy models dynamically guide its output. This is a non-invasive, “plug-and-play” approach, meaning it requires no changes to the target model’s internal parameters or architecture. At each step of text generation, the FAP and HDP process the same context as the target model.

A “factuality steering vector” is then computed as the difference between the FAP’s and HDP’s predictions. This vector essentially captures a directional preference: it amplifies factual tokens and suppresses hallucinatory ones. This steering vector is then injected into the target model’s native predictions, adjusting them in real-time. The next token is then sampled from these adjusted predictions, effectively nudging the generation process towards factually consistent outputs and away from potential hallucinations.

Demonstrated Effectiveness

Experiments on well-known benchmarks, TruthfulQA and BioGEN, showcase DSCC-HS’s impressive performance. On TruthfulQA, DSCC-HS achieved a 49.82% accuracy and a 99.2% Factual Consistency Rate (FCR), while significantly reducing the hallucination score to 0.8. These results notably outperform other strong methods like ITI and DOLA.

For long-form text generation on the BioGEN benchmark, DSCC-HS attained the highest FActScore of 46.50 and the lowest incorrectness rate of 11.49%. This demonstrates its robustness in producing factually consistent long texts, which is crucial for knowledge-intensive applications.

Ablation studies confirmed that each core component of DSCC-HS – the iterative training, the proxy guidance mechanism, and the adversarial negative model (HDP) – is essential for achieving its high performance. The iterative training process, in particular, was shown to progressively refine the FAP’s ability to provide an effective steering signal, leading to consistent performance gains.

DSCC-HS represents a significant step forward in making LLMs more reliable by proactively suppressing hallucinations. By integrating cognitive principles with neural architectures, this framework offers a principled, efficient, and scalable solution for enhancing the factual accuracy of large language models.
