New Autoencoder Design Speeds Up High-Resolution Image Generation

TLDR: DC-AE 1.5 is a new autoencoder designed to accelerate the convergence of high-resolution diffusion models. It addresses the issue of slow convergence and poor generation quality when using a large number of latent channels by introducing a Structured Latent Space, which organizes channels for object structure and details, and Augmented Diffusion Training, which accelerates learning on object channels. This results in faster training and improved image generation quality, enabling more efficient and higher-quality latent diffusion models.

Latent Diffusion Models, or LDMs, have become a leading method for creating high-resolution images. These models use a component called an autoencoder to compress large images into smaller, more manageable representations, known as latent representations. This compression significantly reduces the computational effort required for the diffusion model to operate.

A common strategy to enhance the quality of images reconstructed by these autoencoders is to increase the number of ‘latent channels.’ Think of latent channels as different layers of information within the compressed image data. While more channels can lead to better reconstruction quality, a significant challenge arises: it drastically slows down the diffusion model’s training process, often resulting in lower overall image generation quality despite the improved reconstruction.

This slowdown is a major hurdle, limiting the ultimate quality achievable by latent diffusion models and making it difficult to use autoencoders with higher compression ratios, which would otherwise offer greater efficiency.

Researchers have identified that this issue stems from a ‘sparsity problem’ within the latent space when many channels are used. Essentially, as the number of latent channels grows, many of them become dedicated to capturing fine image details, while the channels responsible for capturing the main object structures become sparse or less prominent. This makes it harder for the diffusion model to learn and reproduce the overall object shapes accurately, leading to slower convergence and distorted structures in the generated images.

To address this, a new approach called DC-AE 1.5 has been introduced. This innovation brings two key advancements:

Structured Latent Space

This is a training-based method that imposes a specific organization on the latent space. It ensures that the initial latent channels primarily capture the broad object structures and semantics, while the later channels focus on adding intricate image details. This structure is achieved during the autoencoder’s training by randomly masking out certain channels. This forces the autoencoder to learn to reconstruct images even from partial latent information, naturally creating the desired channel-wise hierarchy. This method maintains the same reconstruction quality as previous autoencoders but with the added benefit of a structured latent space.

Augmented Diffusion Training

Building upon the structured latent space, this strategy accelerates the diffusion model’s learning, especially concerning object structures. During diffusion training, a random channel-wise mask is applied to the latent features. This augmentation explicitly adds training objectives on the ‘object latent channels,’ making it easier and faster for the diffusion model to learn how to generate coherent object structures.

The combination of these two techniques in DC-AE 1.5 significantly speeds up the convergence of diffusion models, particularly when using a large number of latent channels. This leads to much better image generation quality. For instance, on ImageNet 512×512, DC-AE 1.5 can achieve a 4x speedup compared to its predecessor while delivering superior image quality. It also improves the ‘scaling curve’ of diffusion models, meaning that as models become larger, the quality improvements are more substantial and consistent.

This advancement not only boosts the quality ceiling for latent diffusion models but also opens the door for using autoencoders with even higher spatial compression ratios, pushing the boundaries of efficiency in high-resolution image synthesis.
