NEURORVQ: Enhancing EEG Signal Tokenization for Advanced Brainwave Models

TLDR: NEURORVQ is a new Large Brainwave Model (LBM) that introduces a state-of-the-art tokenizer for Electroencephalography (EEG) signals. It uses multi-scale feature extraction, hierarchical Residual Vector Quantization (RVQ) codebooks, and a specialized phase- and amplitude-aware loss function. This allows NEURORVQ to accurately reconstruct EEG signals across all frequency bands, significantly reducing reconstruction error compared to existing methods. It also outperforms other LBMs on various downstream BCI classification tasks, demonstrating its effectiveness and generalization capabilities for brainwave modeling.

The realm of Brain-Computer Interfaces (BCIs) is experiencing rapid growth, promising direct communication between the human brain and external technologies. At the heart of these systems lies the challenge of accurately interpreting brainwave signals, particularly those captured by Electroencephalography (EEG) devices. EEG signals are incredibly rich, reflecting neural activity across a spectrum of temporal and spectral scales, yet their inherent complexity makes effective processing and representation a significant hurdle.

In recent years, the landscape of brainwave analysis has been transformed by Large Brainwave Models (LBMs), which draw inspiration from the success of foundation models in natural language processing and computer vision. These LBMs are trained to predict masked signal-tokens, aiming to learn generalizable representations of brain activity. However, a persistent bottleneck for these models has been the performance of their signal tokenization modules. Current neural tokenizers often fall short in preserving high-frequency dynamics, which limits their ability to reconstruct EEG signals with high fidelity.

Introducing NEURORVQ: A New Era in EEG Tokenization

A groundbreaking solution, named NEURORVQ, has emerged to tackle these limitations. This innovative system introduces a novel codebook-based tokenizer at the core of a scalable Large Brainwave Model. NEURORVQ’s primary focus is on enhancing how raw EEG signals are converted into discrete, meaningful tokens.

The NEURORVQ tokenizer is built upon three key innovations:

First, it incorporates multi-scale feature extraction modules. These modules are designed to capture the full frequency spectrum of neural activity, ensuring that both the slow and fast dynamics of brainwaves are comprehensively represented.

Second, NEURORVQ utilizes hierarchical Residual Vector Quantization (RVQ) codebooks. These codebooks facilitate high-resolution encoding of EEG signals, enabling the system to capture the intricate patterns essential for accurate signal reconstruction. The architecture employs 32 codebooks, providing a robust framework for detailed representation.

Third, the training process for NEURORVQ’s tokenizer is guided by a specialized EEG signal phase- and amplitude-aware loss function. This function is critical for efficient training, as it intelligently addresses the periodic nature of brainwave phases and prioritizes the reconstruction of high-frequency components—an area where existing tokenizers often struggle. Instead of directly reconstructing raw phase, it employs sine and cosine representations, and for amplitude, it operates in the log-amplitude domain to effectively manage the broad dynamic range of EEG spectra.

This sophisticated design allows NEURORVQ to achieve efficient EEG compression while maintaining precise reconstruction across all frequency bands. This capability is paramount for robust generative masked modeling, where the model learns to infer missing segments of brainwave signals.

Performance Beyond Current Standards

Empirical evaluations highlight NEURORVQ’s superior performance compared to existing LBMs. It demonstrates significantly lower reconstruction error, not only for signals it was trained on (in-distribution) but also for entirely new, unseen datasets (out-of-distribution). For instance, in in-distribution validation, NEURORVQ achieved orders-of-magnitude lower mean squared error across all frequency bands when compared to LaBraM, a leading codebook-based method. Similar impressive results were observed in out-of-distribution tests involving motor and working memory datasets.

Beyond its exceptional reconstruction quality, NEURORVQ also excels in various downstream tasks. When fine-tuned for classification challenges such as motor imagery, working memory, sleep stage classification, and eyes open/closed detection, NEURORVQ consistently achieved the best or next-best accuracy in each task, and the highest overall mean accuracy among other prominent LBMs like NeuroGPT, CBraMod, BIOT, EEGPT, and LaBraM. Remarkably, NEURORVQ accomplishes this with a relatively compact model size, underscoring the efficiency and effectiveness of its tokenizer.

The NEURORVQ tokenizer lays a strong foundation for the development of general-purpose brainwave models that leverage codebooks. This advancement promises significant progress in critical areas such as neural decoding, generative modeling of brain activity, and the seamless integration of multimodal biosignals.
