TLDR: A new neuromorphic solution, CLP-SNN, implemented on Intel’s Loihi 2 chip, enables real-time continual learning for edge AI systems. It addresses challenges like catastrophic forgetting and power constraints by using brain-inspired mechanisms such as event-driven local learning, a self-normalizing learning rule, neurogenesis, and metaplasticity. CLP-SNN achieves competitive accuracy with existing methods while being significantly faster (70x) and more energy-efficient (5,600x) than the best alternative on edge GPUs, demonstrating a breakthrough in accuracy-efficiency trade-offs for future edge AI.
Artificial intelligence systems deployed on edge devices, such as robots, drones, and wearables, face a significant hurdle: adapting to ever-changing environments where new data and concepts constantly emerge. Traditional AI models are typically trained offline and then deployed as static entities. This approach struggles in dynamic, ‘open-world’ settings, leading to a decline in accuracy as data distributions shift over time. While periodic retraining can help, it’s often too slow and power-intensive for resource-constrained edge platforms. Even advanced large language and vision models, capable of in-context learning, demand cloud-scale accelerators and vast memory, making them impractical for energy-limited edge devices.
The solution lies in Online Continual Learning (OCL), where models learn incrementally from non-stationary data streams without forgetting previously acquired knowledge – a phenomenon known as catastrophic forgetting. However, developing OCL algorithms and hardware that meet the strict latency and memory budgets of edge devices has been a persistent challenge.
Interestingly, biological brains have mastered continual learning through mechanisms like metaplasticity (stabilizing memories), neurogenesis (expanding capacity), local learning rules, and asynchronous, event-driven communication. Spiking Neural Networks (SNNs) naturally align with these biological principles, and neuromorphic processors like Intel’s Loihi 2 are designed to exploit these properties in silicon, integrating memory and compute within each core and using sparse, event-based communication.
A new neuromorphic solution called CLP-SNN (Continually Learning Prototypes – Spiking Neural Network) has been developed and implemented on Intel’s Loihi 2 chip to address these challenges. This approach introduces three key innovations:
Event-Driven Local Learning
Unlike conventional deep learning that relies on dense, global updates (like backpropagation), CLP-SNN uses event-driven and spatiotemporally sparse local learning. This means weight updates only occur when and where spikes happen, making the learning process highly efficient and rapid.
Self-Normalizing Learning Rule
CLP-SNN employs a novel three-factor learning rule that maintains weight normalization implicitly. This is crucial because explicit normalization, which involves global operations to compute and apply vector norms, is biologically implausible and computationally inefficient for neuromorphic hardware.

Integrated Neurogenesis and Metaplasticity
The architecture incorporates neurogenesis, allowing the system to allocate new neurons (prototypes) on demand when it encounters unfamiliar concepts, effectively expanding its capacity. Metaplasticity mechanisms modulate the plasticity (learning rate) of prototypes over time, consolidating mature memories and protecting them from interference, thereby mitigating catastrophic forgetting.
In the CLP-SNN architecture, prototypes are modeled as neurons, storing their representative vectors in the neuron’s input weights. The system identifies the ‘winning’ prototype by detecting the earliest spike, using a winner-take-all mechanism. A novelty detection neuron identifies new inputs, triggering the allocation of a new prototype neuron. A modulator neuron relays feedback signals, guiding the learning process based on prediction correctness or novelty.
Evaluated on OpenLORIS few-shot learning experiments, CLP-SNN achieves accuracy competitive with replay-based methods, but without requiring large memory buffers for data rehearsal. The efficiency gains are truly transformative: CLP-SNN is 70 times faster (0.33ms vs 23.2ms) and 5,600 times more energy-efficient (0.05mJ vs 281mJ) than the best alternative OCL method running on an edge GPU. Even compared to the simplest conventional OCL method (NCM), CLP-SNN shows significant improvements in energy-delay product and latency, while also achieving higher accuracy.
The performance benefits stem from the co-design of brain-inspired algorithms and neuromorphic hardware. Loihi 2’s hardware-level learning acceleration, programmable neurons, and event-driven communication are perfectly suited for CLP-SNN’s sparse and local learning mechanisms. The research highlights that both input sparsity (sparse feature vectors) and, more critically, temporal sparsity of learning (intermittently executing the learning rule) contribute significantly to speed and energy efficiency.
This work demonstrates that co-designed brain-inspired algorithms and specialized neuromorphic hardware can break traditional accuracy-efficiency trade-offs, paving the way for real-time adaptive AI systems on the edge.
