Recent advancements have seen a shift from discrete-time models, like Recurrent Neural Networks (RNNs), towards continuous-time formulations, such as Neural Ordinary Differential Equations (Neural ODEs). While these continuous models are better at capturing underlying dynamics and offer benefits like interpolative capacities for irregularly sampled data and more accurate extrapolation, they often depend solely on initial values and lack the adaptability needed for complex time series with frequent disturbances.
A new research paper, titled “Neural Predictive Control to Coordinate Discrete- and Continuous-Time Models for Time-Series Analysis with Control-Theoretical Improvements,” introduces a novel approach called Neural Predictive Control (NPC). This method re-frames time-series problems as optimal control problems based on continuous ODEs. Instead of merely learning dynamics from data, NPC optimizes ‘control actions’ that guide ODE trajectories towards specific task objectives, thereby bringing robust control-theoretical performance guarantees.
How Neural Predictive Control Works
The core innovation of NPC lies in its coordinated use of both discrete- and continuous-time models. A discrete-time model, such as an RNN, processes past sequences to generate a sequence of ‘control actions’ for multiple future time steps (an M-horizon prediction). These predicted actions then serve as inputs to a continuous-time model, like a Neural ODE, to modulate its evolution. This allows NPC to effectively extract long-term temporal features from the discrete model to influence and adapt the short-term continuous dynamics.
During training, NPC employs a strategy known as Model Predictive Control (MPC). This involves solving a multi-horizon optimization problem at each step to plan future trajectories and minimize a task-specific cost. Critically, only the first optimal control action from this multi-step plan is implemented, and the process is then repeated. This greedy approach, as the researchers demonstrate, leads to exponential convergence towards ideal, long-term solutions, ensuring robust and generalizable performance.
Key Advantages and Performance
The researchers, Haoran Li, Muhao Guo, and Yang Weng from Arizona State University, along with Hanghang Tong from the University of Illinois at Urbana-Champaign, highlight several significant advantages of NPC. The model offers strong theoretical guarantees regarding stability and generalizability, meaning it can maintain performance even when faced with unexpected data variations or disturbances. This is a crucial improvement over existing methods that often focus on single-horizon evaluations, neglecting the long-term impact of actions.
Extensive experiments on diverse time-series datasets, including Human Activity Recognition (HAR), UCR Time Series Archive, and Photovoltaic (PV) datasets, validate NPC’s superior performance. For classification tasks, NPC showed a notable increase in accuracy, ranging from 5% to 15% compared to state-of-the-art baselines. In regression tasks, such as interpolation and extrapolation on PV datasets, NPC achieved a substantial reduction in mean squared error, between 30% and 60%. The model also demonstrated high stability on synthetic datasets, showing a larger classification margin and less deviation under test deviations.
Furthermore, NPC is designed to be highly scalable for high-volume and multi-dimensional time series, benefiting from the efficient parallel computations inherent in both discrete- and continuous-time models. While the training time for NPC is higher due to additional ODE computations, its test-time efficiency remains comparable to other models, making it practical for real-time predictions.

Future Directions
Despite its impressive performance, the authors acknowledge the limitation of increased training time.
