MGAudio: A Self-Guiding Framework for Advanced Video-to-Audio Generation

TLDR: MGAudio is a new flow-based framework for open-domain video-to-audio generation that uses a novel model-guided dual-role alignment approach. Unlike previous methods relying on classifier-free guidance, MGAudio guides itself through a dedicated training objective, integrating a scalable Transformer, a dual-role audio-visual encoder, and a model-guided objective. It achieves state-of-the-art performance on VGGSound and UnA V-100 datasets, demonstrating superior generation quality, cross-modal coherence, and remarkable data efficiency, even with only 10% of training data. The framework’s model-guided training proves more robust and efficient than traditional classifier-free guidance.

Generating realistic and synchronized audio for videos, a process known as video-to-audio (V2A) generation, is crucial for applications like Foley sound synthesis in film and enriching silent videos. However, achieving high-fidelity sound that is semantically aligned and temporally synchronized with visual content has been a significant challenge.

Traditional methods, including those based on Generative Adversarial Networks (GANs) and autoregressive Transformers, often struggle with consistency. More recent approaches leverage diffusion models, which have shown promise but typically rely on a technique called classifier-free guidance (CFG). While effective, CFG involves randomly dropping conditioning signals during training, which can sometimes dilute the model’s learning capacity and lead to inconsistencies during inference.

Introducing MGAudio: A New Approach to Video-to-Audio Generation

A new research paper introduces MGAudio, a novel framework designed to overcome the limitations of previous V2A methods. MGAudio stands out by employing a ‘model-guided dual-role alignment’ as its core principle. Instead of relying on external classifiers or the multi-task setup of CFG, MGAudio enables the generative model to guide itself through a specialized training objective tailored for video-conditioned audio generation.

The MGAudio framework integrates three key components:

1. A Scalable Flow-Based Denoising Transformer (FBDT): This component builds on advanced generative modeling techniques, learning continuous transport directions from noise to data, which is more stable and efficient than traditional diffusion processes.

2. A Dual-Role Audio-Visual Encoder (DRAVE): Unlike prior works that might only use the video encoder, MGAudio fully leverages a Contrastive Audio-Visual Pretraining (CAVP) strategy. The CAVP video encoder conditions the audio generation process, while the CAVP audio encoder provides auxiliary representations for ‘audio-audio alignment,’ significantly enhancing representation learning and generation quality.

3. An Audio Model-Guidance (AMG) Training Objective: This is MGAudio’s most distinctive feature. It replaces the conventional CFG objective with a model-guidance approach. The AMG objective provides direct supervision by refining the model’s predictions to align more effectively with the video context, leading to more efficient training and improved generation quality.

Exceptional Performance and Efficiency

MGAudio has achieved state-of-the-art performance on the challenging VGGSound dataset, a benchmark for video-to-audio generation. It significantly reduces the Fréchet Audio Distance (FAD) to 0.40, outperforming even the best classifier-free guidance baselines. The model also consistently surpasses existing methods across other important metrics like Fréchet Distance (FD), Inception Score (IS), and alignment accuracy.

One of MGAudio’s most impressive findings is its strong data efficiency. When trained on just 10% of the VGGSound dataset, it still manages to outperform many existing methods that use the full dataset. This suggests that the model-guided training approach promotes highly efficient learning by effectively leveraging the conditional structure of the task, and that data quality might be more critical than sheer quantity in some cases.

Furthermore, MGAudio demonstrates robust generalization capabilities, performing exceptionally well on the UnA V-100 benchmark without any fine-tuning. This highlights its ability to transfer learned knowledge to diverse audio-visual events not encountered during initial training.

Model Guidance vs. Classifier-Free Guidance

The researchers conducted extensive studies comparing MGAudio’s model-guided approach with traditional CFG. They found that while model-guided training alone is powerful, combining MGAudio-trained models with CFG during inference further boosts audio generation quality, achieving the highest fidelity. Crucially, MGAudio’s model-guided training strategy itself proved superior to conventional CFG training, indicating its effectiveness as a core learning mechanism.

Visualizations of generated audio distributions also showed that MGAudio produces samples that cluster more tightly around real sample distributions, reflecting stronger class consistency and diversity compared to CFG-based methods.

Future Directions and Limitations

While MGAudio marks a significant advancement, the paper acknowledges certain limitations. The model is less effective at generating human vocalizations or linguistically complex audio, such as dialogue or singing, especially from subtle visual cues. Its primary optimization is for general audio effects and ambient sounds. Additionally, inference speed remains an area for improvement, as it relies on an iterative sampling process.

In conclusion, MGAudio presents a powerful and scalable paradigm for conditional video-to-audio generation, setting new benchmarks in performance and data efficiency. The code for MGAudio is publicly available for further exploration and development.
