Making GUI Agents More Accurate Across Screen Resolutions

TLDR: A new framework improves GUI grounding (mapping language to pixel coordinates) for autonomous agents. It introduces RULER tokens for explicit coordinate referencing, making predictions more stable and generalizable across different screen resolutions. Additionally, Interleaved MRoPE (I-MROPE) enhances spatial encoding by balancing frequency components, leading to more precise localization. Experiments show consistent accuracy gains, especially on high-resolution interfaces, with minimal computational cost.

Autonomous agents are becoming increasingly sophisticated, capable of performing complex tasks by interacting with graphical user interfaces (GUIs) just like humans do. A critical component of this capability is ‘GUI grounding,’ which involves translating natural language instructions into precise pixel coordinates on a screen. Imagine telling an AI, “Click the ‘Record Sound’ button,” and it accurately identifies and clicks the exact pixel location. This seemingly simple task is, however, a significant challenge for current Vision-Language Models (VLMs).

The core difficulty lies in what researchers call ‘implicit patch-to-pixel mapping.’ Existing methods often force models to infer complex relationships between visual features and exact pixel coordinates without explicit guidance. This implicit learning breaks down when agents encounter high-resolution displays or screen sizes they haven’t seen during training, leading to inaccurate predictions and failures. Furthermore, a technical limitation in how these models encode spatial information, specifically with standard Multidimensional Rotary Positional Embedding (MRoPE), creates an imbalance in how width and height dimensions are represented, further hindering precision.

Introducing RULER Tokens for Explicit Coordinate Mapping

To overcome these challenges, a new framework introduces two key innovations. The first is RULER (Rotary position-to-pixeL mappER) tokens. These auxiliary tokens act like explicit coordinate markers, similar to gridlines on a map. Instead of trying to guess coordinates from scratch, the model can now reference the nearest RULER token and make small adjustments to pinpoint the exact location. This transforms an unstable prediction problem into a more robust ‘reference-and-adjustment’ mechanism, significantly improving accuracy and generalization, especially on high-resolution interfaces.

Interleaved MRoPE for Balanced Spatial Encoding

The second innovation, Interleaved MRoPE (I-MROPE), addresses the frequency imbalance issue in standard positional encodings. Traditional MRoPE assigns different frequency bands sequentially to width and height dimensions, leading to uneven spatial modeling. I-MROPE, however, interleaves these frequency components, ensuring that both width and height receive a full spectrum of high and low frequencies. This results in more balanced and accurate spatial representations, allowing the model to distinguish positions along both axes equally well.

Consistent Gains and Efficiency

Extensive experiments on benchmarks like ScreenSpot, ScreenSpot-V2, and the challenging ScreenSpot-Pro (which features high-resolution displays beyond training data) demonstrate consistent improvements in grounding accuracy. For instance, on ScreenSpot-Pro, the accuracy improved from 31.1% to 37.2% through fine-tuning alone. These gains are achieved with minimal computational overhead, as RULER tokens add less than 1% to the total token count, even for 8K displays. This makes the approach practical for real-world deployment.

By providing explicit spatial guidance rather than relying on implicit learning, this new framework enables more reliable GUI automation across diverse resolutions and platforms, paving the way for more capable and accurate autonomous agents.
