LLMCOMP: Advancing Scientific Data Compression with Large Language Models

TLDR: LLMCOMP is a novel framework that applies decoder-only large language models (LLMs) to achieve error-bounded lossy compression of scientific data. It transforms continuous 3D scientific fields into discrete token sequences using Z-order curves and Lloyd-Max quantization, then trains an autoregressive transformer with spatiotemporal embeddings. During compression, a top-k prediction strategy stores rank indices or fallback corrections to ensure strict error bounds. Experiments show LLMCOMP consistently outperforms state-of-the-art compressors, achieving up to 30% higher compression ratios under tight error bounds, demonstrating the potential of LLMs for efficient and accurate scientific data management.

The world of scientific research is generating an unprecedented amount of data, from climate simulations to atmospheric observations. These massive datasets, often spanning terabytes, present a significant challenge for storage and transmission. While traditional compression methods exist, they often struggle to maintain accuracy under strict error bounds or fail to capture the complex, non-linear patterns inherent in scientific fields.

Enter LLMCOMP, a groundbreaking new approach that harnesses the power of large language models (LLMs) to tackle this very problem. Developed by researchers from KAUST, the University of Peloponnese, and their collaborators, LLMCOMP introduces a novel lossy compression paradigm specifically designed for error-bounded scientific data. The research paper detailing this innovation can be found here: LLMCOMP: A Language Modeling Paradigm for Error-Bounded Scientific Data Compression.

Rethinking Compression with LLMs

Traditionally, LLMs like GPT and LLaMA have excelled at understanding and generating human language. LLMCOMP, however, redefines their role by formulating scientific data compression as a ‘token-level sequence modeling’ task. This means it treats continuous scientific values as discrete tokens, much like words in a sentence, and then uses an LLM to predict the sequence of these tokens.

The process begins by taking complex 3D scientific fields, such as temperature data over space and time, and transforming them into a 1D sequence. This is achieved using a ‘Z-order curve,’ a technique that helps preserve the spatial relationships between data points even after flattening. Following this, a ‘Lloyd-Max quantization’ method converts the continuous numerical values into discrete token IDs, ensuring that any conversion error remains within a specified limit.

To ensure the LLM understands the original context of each token, LLMCOMP augments them with their precise spatial (x,y) and temporal (t) coordinates. This ‘spatiotemporal positional augmentation’ allows the model to capture intricate cross-dimensional dependencies that would otherwise be lost.

Training and Compression: A Smart Approach

Unlike general-purpose LLMs, LLMCOMP trains a decoder-only transformer from scratch, specifically optimized for scientific data. It employs a ‘target-aware sampling’ strategy during training, which ensures the model learns effectively from both common and rare data patterns, preventing overfitting and improving generalization. A hybrid loss function, combining classification and regression objectives, further refines the model’s ability to predict tokens accurately while maintaining physical fidelity.

During the actual compression phase, LLMCOMP uses a ‘top-k prediction’ strategy. The model predicts a list of the most likely next tokens. If the correct token is within this ‘top-k’ list, only its rank (e.g., 1st, 2nd, 3rd) is stored. If the correct token isn’t in the top-k, the actual token and its position are stored as a ‘fallback correction.’ This ingenious method guarantees strict error bounds for reconstruction while achieving high compression efficiency.

Impressive Results and Key Insights

Extensive experiments on large-scale datasets like Redsea and ERA5 reanalysis data demonstrated LLMCOMP’s superior performance. It consistently outperformed state-of-the-art error-bounded lossy compressors such as SPERR, ZFP, SZ 3.1, and HPEZ, achieving up to 30% higher compression ratios, especially under strict error bounds.

The research also provided valuable insights into the factors influencing compression:

  • The ‘top-k’ value needs to be balanced; while higher ‘k’ improves accuracy, it can reduce the compression ratio beyond a certain point.
  • An optimal ‘vocabulary size’ is crucial for balancing quantization resolution and prediction accuracy.
  • A moderate ‘context length’ (e.g., 32 tokens) offers the best trade-off between compression and training cost.
  • ‘Target-aware sampling’ significantly boosts accuracy and compression by ensuring diverse token representation during training.
  • The ‘Z-order curve’ for data linearization is vital for preserving spatial locality and enhancing the LLM’s predictive power.
  • Interestingly, a ‘Base’ model size (345 million parameters) achieved the best results, suggesting that excessively large models might overfit and reduce compression efficiency.
