LeanTree: Enhancing Automated Theorem Proving in Lean 4 with Structured Proof States

TLDR: LeanTree is a new tool and dataset designed to advance automated theorem proving (ATP) in Lean 4. It focuses on improving ‘white-box’ ATP methods by factorizing complex proof states into simpler, independent branches. This approach allows for more efficient, parallelized proof searches and provides richer training data for AI models, addressing limitations of traditional ‘black-box’ methods. Preliminary results suggest that providing intermediate proof state information significantly boosts proof search performance.

Automated theorem proving (ATP) has long been a fundamental challenge in artificial intelligence. It involves using computers to prove mathematical theorems or logical statements. However, this field faces significant hurdles due to the immense number of possible states and actions a system can take during a proof, often referred to as a combinatorial explosion.

Recently, large language models (LLMs) have emerged as a promising tool to guide ATP systems. While LLMs can suggest steps, they don’t inherently guarantee correctness, meaning their outputs must be verified by a formal proof checker. This interaction typically follows one of two paths: ‘black-box’ or ‘white-box’ approaches.

Black-box methods treat the proof process as a single input-output problem, where the LLM generates an entire proof without receiving feedback on intermediate steps. The formal verifier only checks the final proof. While these methods have benefited greatly from recent LLM advancements, they lack the ability to utilize intermediate proof states.

In contrast, ‘white-box’ approaches allow for incremental proof construction, where the system interacts with a proof verifier at each step, examining intermediate proof states. This provides valuable feedback and allows for more guided search. However, white-box methods have not seen the same level of improvement as black-box ones, largely due to a lack of suitable tools and datasets.

Addressing this gap, researchers have introduced LeanTree, a novel system designed to accelerate white-box proof search in Lean 4, a popular formal language for theorem proving. LeanTree consists of two key components: a specialized tool built within Lean 4 and a new dataset of preprocessed proof states.

The LeanTree tool is designed to factorize complex proof states into simpler, independent branches. Imagine a complicated proof as a large puzzle; LeanTree breaks it down into smaller, manageable sub-puzzles that can be tackled individually. This factorization offers several advantages: it simplifies the evaluation of proof steps, reduces the amount of context an LLM needs to consider, generates richer training data for AI models, enables parallel search across multiple independent states, supports efficient reuse of previously solved states, and provides immediate feedback in case of errors.

A crucial aspect of LeanTree’s factorization is its ability to handle ‘metavariable coupling.’ This occurs when different parts of a proof are interconnected because they share an undecided variable. LeanTree intelligently detects these dependencies, ensuring that coupled goals are not split, maintaining the logical integrity of the proof.

The second component of LeanTree is its comprehensive dataset. This dataset comprises preprocessed proofs from two significant sources: Mathlib, Lean’s standard library of human-written proofs, and DeepSeek-Prover-V1, a collection of automatically formalized proofs. This dataset is structured to reveal intermediate proof states in a simplified, factorized format, making it ideal for training machine learning models that can learn to navigate proof searches more effectively.

Preliminary experiments conducted with LeanTree hint that white-box approaches, when facilitated by this new tooling, can outperform black-box alternatives in certain settings. By providing LLMs with access to internal proof states, LeanTree helps improve the overall performance of automated theorem proving.
