Improving Secret Audio Recovery with Time-Domain Speech Hiding

TLDR: This paper introduces “WavInWav,” a novel deep learning method for hiding a complete secret audio segment within a cover audio. It uses a flow-based invertible neural network to directly embed and extract messages in the time domain, avoiding quality degradation common in frequency-domain methods. By applying a time-frequency loss and incorporating encryption, WavInWav achieves significantly higher quality for recovered secret audio, maintains imperceptibility of the hidden data, and shows robustness against various noises, outperforming previous approaches.

In the digital age, where communication relies heavily on various media, the need for secure data transmission is paramount. Data hiding, the art of concealing secret information within ordinary digital files without noticeable changes, plays a crucial role in this security landscape. While traditional methods have existed for some time, recent advancements in Deep Neural Networks (DNNs) have opened new avenues for more effective and robust data hiding.

However, previous attempts at hiding audio within other audio files, particularly those relying on time-frequency transformations like the Short-Time Fourier Transform (STFT), often faced a significant challenge: the quality of the recovered secret audio was frequently unsatisfactory. This degradation stemmed from inherent limitations in modeling time-frequency relationships and the lossy nature of these transformations, which could lead to unrealistic amplitude spectra for the recovered secret audio.

A new research paper, titled “WavInWav: Time-domain Speech Hiding via Invertible Neural Network” by Wei Fan, Kejiang Chen, Xiangkun Wang, Weiming Zhang, and Nenghai Yu, addresses these limitations head-on. The authors introduce a novel DNN-based approach that significantly enhances the quality of recovered secret audio while maintaining the imperceptibility of the hidden message.

A Fresh Approach: Time-Domain Hiding with Invertible Networks

The core innovation of WavInWav lies in its use of a flow-based invertible neural network (INN) to establish a direct link between the stego audio (the cover audio with the secret hidden inside), the original cover audio, and the secret audio. Unlike previous methods that often operated in the frequency domain, WavInWav directly models the hiding and revealing processes in the time domain. This crucial shift avoids the distortions introduced by STFT-inverse STFT transformations and the complex problem of reconstructing audio from potentially invalid spectrograms.

Invertible neural networks are particularly well-suited for this task because they are designed for precise, bidirectional transformations. This means the same network architecture and parameters can be used for both embedding the secret message (the forward concealing process) and extracting it (the backward revealing process), enhancing the reversibility and accuracy of the entire system.

Balancing Fidelity and Perception with Time-Frequency Loss

While operating in the time domain, the researchers recognized the importance of time-frequency relationships for human auditory perception. To ensure that the stego audio closely matches the cover audio in terms of how it sounds, and that the recovered secret audio is of high quality, they implemented a multi-resolution time-frequency loss function. This innovative approach retains the benefits of time-frequency constraints without directly performing lossy time-frequency transformations on the signal itself, thereby improving the quality of both the stego and the recovered secret audio.

Enhanced Security and Robustness

Beyond quality, security is a critical aspect of data hiding. WavInWav incorporates an encryption technique to protect the hidden data from unauthorized access. The original secret audio is segmented into very short fragments and then scrambled using a pseudo-random number generator. Only with the correct decryption key can the original order and content of the secret audio be restored, making unauthorized extraction extremely difficult.

The method also demonstrates impressive robustness against various types of noise. During training, a composite noise layer is introduced to simulate common distortions, allowing the model to efficiently extract secret audio even in challenging channel conditions. This ensures consistently high-quality recovery across different scenarios, including down-sampling, Gaussian noise, speckle noise, and MP3 compression.

Outstanding Performance

Extensive experiments conducted on the VCTK and LibriSpeech datasets showcased the significant superiority of WavInWav. The method consistently outperformed previous approaches in both subjective and objective metrics, including Signal-to-Noise Ratio (SNR), Log-Spectral Distortion (LSD), Perceptual Evaluation of Speech Quality (PESQ), and Speaker Embedding Cosine Similarity (SECS). Notably, the recovered secret audio achieved a remarkable 13-20dB improvement in SNR compared to prior methods.

Subjective listening tests (ABX tests) confirmed that the modifications made to the cover audio by WavInWav are nearly imperceptible to human ears, with listeners distinguishing the stego audio from the cover audio only about 50.75% of the time, close to random guessing. Furthermore, the model demonstrated strong generalization ability to unseen speakers and datasets.

While the WavInWav method marks a significant leap forward in audio data hiding, the authors acknowledge areas for future work, such as enhancing resistance to strong noise attacks and steganalysis techniques, and exploring applications in other audio formats beyond WAV.
