Improving AI Robustness by Disentangling Features with Superclass Guidance

TLDR: A new research paper introduces SupER (Superclass-guided Embedding Representation), a novel method to mitigate spurious correlations in machine learning models. Unlike previous approaches that require auxiliary group or spurious feature annotations, SupER leverages superclass information (e.g., ‘bird’ for ‘waterbird’ and ‘landbird’) to disentangle superclass-relevant and irrelevant features. By guiding the model to focus on essential features and encouraging diverse feature utilization, SupER significantly improves model robustness and generalization across various datasets without needing additional labels, outperforming existing baselines.

Machine learning models have achieved impressive feats in many areas, but they often struggle when the data they encounter during testing is different from the data they were trained on. This issue, known as a distribution shift, frequently arises due to what are called “spurious correlations.”

Understanding Spurious Correlations

Imagine training a model to identify waterbirds. If all the waterbirds in your training data are pictured on water backgrounds, the model might learn to associate “water” with “waterbird.” This is a spurious correlation: the background isn’t what makes a bird a waterbird, but the model might rely on it. When this model then sees a waterbird on land, it might misclassify it because its learned correlation no longer holds true. Existing methods to fix this often require extra information, like specific labels for these “spurious” features or knowing which groups of data are problematic. However, obtaining such detailed annotations is often impractical or impossible in real-world scenarios.

Introducing SupER: A New Approach

Researchers have proposed a novel method called Superclass-guided Embedding Representation (SupER) to overcome these limitations. SupER tackles spurious correlations by leveraging the inherent semantic structure within class labels, specifically by using “superclass” information. A superclass is a broader category; for example, “bird” is a superclass for “waterbird” and “landbird.” The core idea is to guide the model to focus on features truly relevant to the superclass, rather than misleading background elements.

How SupER Works

SupER operates on two main goals:

1. Eliminate Spurious Features: The model aims to disentangle the input image’s features into two parts: those relevant to the superclass (e.g., the bird’s body, beak, feathers) and those irrelevant to it (e.g., the background). To achieve this, SupER uses a special type of neural network called a β-Variational Autoencoder (β-VAE). It also incorporates guidance from a pre-trained vision-language model like CLIP. CLIP is powerful because it understands the relationship between images and text. SupER uses CLIP’s ability to highlight regions in an image that correspond to a text prompt (like “a bird”) to teach its own feature extractors to focus on the correct, superclass-relevant parts.

2. Enhance Feature Diversity: Even after identifying superclass-relevant features, a model might still rely too heavily on just a few of them. For instance, it might focus only on a bird’s beak shape and ignore its feather color. SupER encourages the model to use a diverse set of all available superclass-relevant features for prediction. This prevents the model from learning subtle, internal spurious correlations within the superclass itself, making it more robust.

Key Advantages and Performance

SupER offers several significant advantages:

  • It effectively mitigates spurious correlations by using superclass information and disentangled features.
  • It demonstrates robust generalization to diverse real-world environments, even when spurious correlations are complex or when group information is unavailable during training.
  • Extensive experiments show that SupER consistently outperforms existing methods across multiple datasets, leading to improved generalization to unseen data.

The researchers tested SupER on various datasets designed to expose spurious correlations, including Waterbirds, SpuCo Dogs, MetaShift, and Spawrious. SupER consistently achieved strong performance, particularly in “worst group accuracy,” which measures how well the model performs on the most challenging subgroups of data. This indicates that SupER is not just good on average, but also reliable for minority or unusual cases. It also showed smaller “generalization gaps,” meaning its accuracy was more consistent across different groups within the same dataset.

Visualizations of the model’s attention (called GradCAM maps) clearly show SupER successfully focusing on the superclass-relevant features (like the bird itself) and ignoring spurious ones (like the background). Interestingly, SupER can even correct for some inherent biases present in the guiding CLIP model, leading to more accurate and comprehensive feature attention.

While SupER is highly effective in many scenarios, its performance might be less optimal when spurious features are entirely contained within the superclass itself (e.g., if a specific feather pattern is spuriously correlated with a certain behavior). However, the research suggests that SupER can be combined with other strategies to address such specific cases, opening avenues for future work.

This innovative approach promises to make machine learning models more reliable and fair in real-world applications, especially where detailed auxiliary data is scarce. You can find the full research paper here: Superclass-Guided Representation Disentanglement for Spurious Correlation Mitigation.
