Improved Stochastic Function Learning with Neural Bridge Processes

TLDR: Neural Bridge Processes (NBPs) are a new method for modeling stochastic functions, addressing limitations of previous models like Neural Diffusion Processes (NDPs). In the evolving landscape of artificial intelligence, learning stochastic functions from incomplete data is a fundamental challenge. This involves creating models that can not only generalize well across different tasks but also provide reliable estimates of uncertainty, especially when data is scarce. Traditional methods, such as Gaussian Processes (GPs), have been widely used due to their clear uncertainty quantification. However, they struggle with large datasets and assume a Gaussian distribution, which limits their application in many real-world scenarios.

To overcome these limitations, Neural Processes (NPs) emerged as a flexible alternative, combining the power of neural networks with the principled uncertainty of stochastic processes. While NPs offered improved efficiency and scalability, they often fell short in capturing complex, multi-modal target distributions, leading to a search for more powerful generative mechanisms.

More recently, Neural Diffusion Processes (NDPs) advanced the field by modeling the input-output relationship as a learned diffusion process, significantly enhancing expressivity and sample diversity. Despite their promise, NDPs faced a critical issue: they treated inputs merely as conditional signals within the denoising network, leading to weak input coupling and a semantic mismatch at the diffusion endpoint. This meant the diffusion path was only loosely guided by the inputs, and the final output bore no strong semantic relationship to the initial input supervision.

Introducing Neural Bridge Processes (NBPs)

A new research paper introduces Neural Bridge Processes (NBPs), a novel diffusion-based framework designed to explicitly integrate input supervision throughout the entire diffusion trajectory. Unlike traditional NDPs, NBPs reformulate the forward diffusion kernel to dynamically anchor the process with inputs. This ensures that the generated outputs are coherently guided towards the desired targets from start to finish.

The core innovation lies in a principled bridge coefficient that progressively strengthens the influence of the input as diffusion proceeds. This design provides several key advantages: it generates stronger gradient signals during training, guarantees endpoint coherence (a property often unattainable by traditional NDPs), and offers a more structured and controllable generative path. Importantly, NBPs achieve this by extending the bridge concept to the DDPM (Denoising Diffusion Probabilistic Models) framework using an SNR-aware functional modeling approach, which avoids the computational complexity and deployment challenges associated with SDE-style diffusion bridges.

Validation and Performance

The effectiveness of NBPs was rigorously validated across various tasks. On synthetic data, NBPs consistently outperformed prior Neural Process variants, maintaining stable and accurate predictions even in higher dimensions where other models typically degrade. For instance, in 1D, 2D, and 3D regression tasks using functions sampled from Gaussian Processes, NBPs showed substantial improvements in log-likelihood scores.

In real-world applications, NBPs demonstrated superior performance in electroencephalogram (EEG) signal regression tasks. By masking windows in some of the seven electrode channels and predicting missing values, NBPs consistently surpassed baseline methods across interpolation, reconstruction, and forecasting scenarios. This highlights NBPs’ ability to capture intricate temporal structures and cross-channel dependencies in complex time series data.

Furthermore, NBPs were applied to image regression tasks using the CelebA dataset at 32×32 and 64×64 resolutions. The goal was to predict pixel values based on their spatial coordinates. Under different levels of context sparsity, NBPs consistently achieved lower Mean Squared Error (MSE) compared to NDPs, indicating more stable and reliable predictions. This advantage extended to higher resolutions, underscoring the scalability and robustness of the method.

A significant finding from the experiments is that NBPs do not introduce additional computational overhead. Despite their enhanced capabilities, the proposed NBP model and the baseline NDP consume approximately the same amount of time per epoch. This efficiency stems from the fact that NBP enhances the training signal through a software-level coupling mechanism between inputs and outputs, rather than increasing the model’s structural depth or parameter count.

The introduction of Neural Bridge Processes marks a significant step forward in stochastic function modeling.
