Guaranteed Compression for Interpretable Neural Networks with PolyKAN

TLDR: PolyKAN is a novel theoretical framework designed to compress Kolmogorov-Arnold Networks (KANs) while providing formal guarantees on both model size reduction and approximation error. By leveraging the inherent piecewise polynomial structure of KANs, PolyKAN formulates compression as an optimal polyhedral region merging problem. It introduces a rigorous polyhedral characterization of KANs, develops a theory of epsilon-equivalent compression, and employs an optimal dynamic programming algorithm to achieve minimal compression under specified error bounds with polynomial-time complexity. This work offers a mathematically rigorous approach to making interpretable KANs more parameter-efficient for practical deployment.

Kolmogorov-Arnold Networks (KANs) have recently emerged as a compelling alternative to traditional neural networks like Multi-Layer Perceptrons (MLPs). KANs are celebrated for their enhanced interpretability and strong mathematical foundation, drawing inspiration from the Kolmogorov-Arnold representation theorem. Unlike MLPs that use fixed activation functions, KANs employ learnable spline transformations on their connections, offering unique advantages in understanding how they make decisions.

However, a significant challenge for the practical deployment of KANs has been their parameter efficiency. Each connection in a KAN requires an independent spline function, which in turn has multiple parameters. This can lead to very large models, making them difficult to deploy in resource-constrained environments.

Existing methods for neural network compression, such as pruning or knowledge distillation, often rely on heuristic strategies without formal guarantees. For KANs, the absence of theoretically grounded compression methods has been a notable gap. This is where PolyKAN steps in.

Introducing PolyKAN: A Framework for Provable KAN Compression

A new theoretical framework called PolyKAN has been introduced to address the parameter efficiency problem in KANs. PolyKAN provides formal guarantees on both the reduction in model size and the control of approximation error. It achieves this by leveraging the inherent piecewise polynomial structure of KANs, formulating the compression problem as one of optimal polyhedral region merging.

The framework makes three fundamental contributions:

  1. Polyhedral Characterization of KANs: PolyKAN establishes that the input space partitions of KANs have a highly regular, axis-aligned structure. This is a key distinction from ReLU networks, whose regions can be arbitrary polyhedral complexes. This structural regularity simplifies rigorous theoretical analysis.

  2. Theory of Epsilon-Equivalent Compression: The framework develops a formal theory for merging adjacent polyhedral regions while strictly maintaining error bounds. This includes precise analysis of how errors propagate through multiple network layers.

  3. Optimal Dynamic Programming Algorithm: PolyKAN designs an optimal dynamic programming algorithm that guarantees minimal compression under specified error constraints. This algorithm has polynomial-time complexity, making it computationally feasible for practical KAN architectures.

Essentially, PolyKAN transforms KAN compression from a trial-and-error process into a mathematically rigorous optimization problem with verifiable guarantees. It bridges concepts from spline theory, polyhedral geometry, and algorithm design to create a foundation for trustworthy compression of interpretable neural architectures.

How PolyKAN Works

The core idea behind PolyKAN is to identify and merge adjacent regions within the KAN’s piecewise polynomial structure. Each spline function in a KAN naturally divides its input domain into piecewise polynomial regions. If two adjacent regions can be approximated by a single polynomial within a specified error tolerance (epsilon), then the knot separating them can be eliminated, leading to compression.

The PolyKAN algorithm operates layer by layer. First, it allocates an error budget to each layer based on how errors propagate through the network. Then, for each individual spline function within a layer, it uses a dynamic programming approach to find the minimal number of knots required to achieve the allocated error bound. This ensures that the overall network compression meets the global error tolerance.

Guarantees and Practicality

PolyKAN offers strong theoretical guarantees:

  • Correctness: The algorithm guarantees that the compressed network will satisfy the specified error tolerance.

  • Optimality: For each individual spline function, the algorithm finds the minimal number of knots that achieves the specified error bound.

  • Computational Efficiency: The algorithm has a polynomial-time complexity, meaning it can be applied to realistic network sizes without becoming prohibitively slow.

These guarantees are crucial because they provide confidence that the compressed KAN will maintain its performance within acceptable limits while significantly reducing its size. This opens up new possibilities for deploying interpretable neural networks in scenarios where computational resources or memory are limited, such as on edge devices or in scientific computing.

While PolyKAN represents a significant step forward, the researchers acknowledge limitations and future directions, such as exploring global optimality across all splines simultaneously, refining error allocation strategies, and extending the theory to other spline families. Nevertheless, this work provides a robust foundation for the efficient deployment of interpretable AI.
