GRNGC: A Unified Model for Discovering Causal Relationships in Complex Data

TLDR: GRNGC (Gradient Regularization-based Neural Granger Causality) is a new method for identifying causal relationships in time series data. Unlike previous models that require separate models for each time series, GRNGC uses a single prediction model and infers causality by applying L1 regularization to the gradients between the model’s input and output. This approach significantly reduces computational costs, improves the ability to capture complex interactions, and is flexible enough to work with various neural network architectures. Experiments show GRNGC outperforms existing methods on diverse datasets, including real-world gene regulatory networks.

In the evolving landscape of artificial intelligence and data analysis, understanding cause-and-effect relationships within complex data, particularly time series, is crucial. Granger causality, a widely adopted method, helps determine if past values of one variable can predict the future values of another, thereby identifying temporal order and directional dependence. This is vital for applications ranging from financial markets to climate systems and neuroimaging.

While deep learning has spurred the development of many neural network-based Granger causality models, existing approaches often face significant limitations. Many models use a ‘component-wise’ architecture, meaning a separate model must be built for each time series. This leads to high computational costs, especially with high-dimensional data. Furthermore, these models typically infer causal relationships by imposing sparsity penalties on the first-layer weights of the neural network, which can limit their ability to capture intricate interactions.

Addressing these challenges, researchers Meiliang Liu, Donghui Wen, Xiaoxiao Yang, Yunfang Xu, Zijin Li, Zhengye Si, Xinyue Yang, and Zhiwen Zhao from the School of Artificial Intelligence, Beijing Normal University, have proposed a novel framework called Gradient Regularization-based Neural Granger Causality (GRNGC). This innovative approach significantly streamlines the process by requiring only a single time series prediction model, drastically reducing computational overhead.

The core innovation of GRNGC lies in how it infers causality. Instead of relying on first-layer weights, it applies L1 regularization to the gradient between the model’s input and output. This allows GRNGC to directly extract causal dependencies, enhancing its capacity to capture complex relationships within the data. Another key advantage is its flexibility: GRNGC is not tied to a specific time series forecasting model. It can be implemented with diverse architectures such as Kolmogorov-Arnold Networks (KAN), Multilayer Perceptrons (MLP), and Long Short-Term Memory (LSTM) networks, offering broad applicability.

Numerical simulations conducted on widely used benchmark datasets, including DREAM, Lorenz-96, fMRI BOLD signals, and CausalTime, demonstrate that GRNGC consistently outperforms existing baseline models. Beyond superior performance, it also achieves notable reductions in computational cost. The model’s effectiveness extends to real-world applications, with experiments on DNA, Yeast, HeLa, and bladder urothelial carcinoma datasets validating its ability to accurately reconstruct gene regulatory networks.
