Forecasting Extreme Volatility with Chaotic Oscillatory Transformer Networks

TLDR: COTN (Chaotic Oscillatory Transformer Network) is a novel deep learning model designed to accurately predict complex and volatile systems like financial and electricity markets, especially under extreme conditions. It combines a Transformer architecture with a unique Lee Oscillator activation function, Max-over-Time pooling, and a λ-gating mechanism to capture chaotic dynamics and improve responsiveness. Additionally, an Autoencoder Self-Regressive (ASR) module enhances robustness by detecting anomalies. Experiments show COTN significantly outperforms existing models, offering a powerful tool for forecasting highly unpredictable systems.

Predicting the behavior of complex and rapidly changing systems, such as financial markets and electricity grids, has always been a significant challenge. These systems are known for their unpredictable fluctuations, non-linear interactions, and chaotic patterns, especially during extreme events like market crashes or power grid faults. Traditional forecasting models often struggle to keep up with such volatility, leading to inaccuracies when they are needed most.

To tackle these limitations, researchers have developed a new deep learning model called the Chaotic Oscillatory Transformer Network, or COTN. This innovative approach combines the powerful Transformer architecture, known for its ability to process sequences, with a unique activation function based on the Lee Oscillator. The Lee Oscillator is specifically designed to capture the intricate, chaotic dynamics that are characteristic of volatile systems, where standard activation functions often fall short.

How COTN Works

COTN integrates several key components to achieve its enhanced predictive capabilities:

  • Lee Oscillator Activation: At its core, COTN uses a novel Lee Oscillator activation function. Unlike conventional activation functions that provide a single, static output, the Lee Oscillator simulates a dynamic, internal temporal evolution. This allows the network to inherently model and respond to chaotic patterns, making it more sensitive to the rapid, high-frequency fluctuations that often signal significant shifts in volatile systems.
  • Max-over-Time (MoT) Pooling: To make the complex temporal output of the Lee Oscillator practical for deep learning, COTN employs a custom “Max-over-Time” pooling strategy. This method distills the oscillator’s multi-step evolution into a single, salient activation value by selecting the maximum response over a specific internal time period. This effectively creates a unique “meta-activation function” for each type of Lee Oscillator, simplifying its integration into the network while preserving crucial dynamic information.
  • Lambda-Gating Mechanism: COTN also features an adaptive λ-gating mechanism. This control element dynamically balances the influence of the Lee Oscillator’s chaotic responsiveness with the stability provided by a conventional activation function like GELU. This controlled fusion ensures that COTN can effectively capture sharp, non-linear fluctuations without sacrificing learning stability or convergence speed.
  • Autoencoder Self-Regressive (ASR) Module: To enhance robustness, COTN includes an ASR module. This component is designed to detect and isolate abnormal market patterns, such as sudden price spikes or crashes. By identifying and mitigating the impact of these outliers, the ASR module prevents them from corrupting the core prediction process, thereby improving the model’s overall resilience.

Performance and Applications

Extensive experiments have demonstrated COTN’s practical applicability and resilience across various challenging datasets. The model was tested on electricity spot markets (using the ETT dataset) and high-frequency financial markets (A-share stock index data).

The results show that COTN significantly outperforms state-of-the-art deep learning models like Informer by up to 17% and traditional statistical methods such as GARCH by as much as 40%. This superior performance is particularly evident under high-volatility conditions, where COTN’s ability to capture chaotic dynamics and adapt to extreme events gives it a distinct advantage.

COTN represents a powerful tool for navigating real-world market uncertainty and complexity, offering a robust solution for forecasting highly volatile systems under duress. Its innovative design, combining chaotic dynamics with Transformer architecture, marks a significant step forward in predictive modeling for critical infrastructure and financial time series.
