Enhancing Quantum Federated Learning Through Sporadic Noise Mitigation

TLDR: SpoQFL is a new Quantum Federated Learning (QFL) framework that uses “sporadic learning” to combat quantum noise. It dynamically adjusts training based on noise levels from distributed quantum devices, scaling down noisy updates. This improves model robustness, convergence, and efficiency, outperforming traditional QFL by achieving higher accuracy and lower loss on real-world datasets.

In the evolving landscape of artificial intelligence, a groundbreaking approach known as Quantum Federated Learning (QFL) is emerging. This innovative method combines the power of quantum computing with federated learning, allowing multiple devices to collaboratively train a shared model without centralizing sensitive data. This decentralized approach is particularly beneficial for maintaining data privacy and reducing communication overhead, especially in quantum networks.

However, QFL faces a significant hurdle: quantum noise. Modern quantum devices are susceptible to varying levels of noise due to hardware imperfections and quantum decoherence, which can severely impact training performance. This noise introduces errors into computations, alters learning dynamics, and slows down the convergence of models, making it challenging to achieve consistent training across distributed quantum devices.

To overcome this challenge, researchers have introduced SpoQFL, a novel QFL framework designed to mitigate the effects of quantum noise heterogeneity. SpoQFL employs a unique strategy called sporadic learning. This mechanism dynamically adjusts the training process based on the observed noise levels from each participating quantum device. Essentially, if a device is experiencing high noise, its updates are scaled down, preventing unstable or noisy contributions from negatively affecting the global model. Conversely, stable updates from less noisy devices are allowed to proceed normally.

This adaptive approach significantly enhances the robustness and stability of the QFL model, leading to more consistent convergence and improved overall learning efficiency. Extensive experiments conducted on real-world datasets, such as CIFAR-10 and CIFAR-100, have demonstrated SpoQFL’s superior performance compared to conventional QFL methods. It achieved notably higher accuracy and reduced loss values, proving its effectiveness in noisy quantum environments.
