Enhancing Multi-Turn LLM Agents with Information Gain Rewards

TLDR: Information Gain-based Policy Optimization (IGPO) is a new reinforcement learning framework for training multi-turn LLM agents. It provides dense, intrinsic, turn-level rewards based on the marginal increase in the policy’s probability of producing the correct answer, combined with final outcome rewards. This approach addresses sparse reward issues and advantage collapse, leading to higher accuracy and improved sample efficiency, especially for smaller models, without relying on external reward models or costly Monte Carlo estimation.

Large language models (LLMs) are becoming increasingly capable of interacting with external environments, especially through the use of tools like web search. This is a crucial step towards creating truly intelligent systems. However, training these LLM-based agents, particularly for tasks that require multiple steps or “turns” of interaction, faces a significant challenge: how to provide effective feedback during the learning process.

Traditional methods often rely on “outcome-based” rewards, meaning the agent only receives feedback at the very end, when a final answer is produced. Imagine trying to learn a complex skill where you only find out if you succeeded or failed right at the end, without any guidance on the intermediate steps. This “sparse reward” problem is particularly difficult in multi-turn scenarios, where an agent might go through many steps before reaching a conclusion. This can lead to two main issues: “advantage collapse,” where all attempts receive the same reward, offering no useful learning signal, and a lack of “fine-grained credit assignment,” making it hard to tell which specific steps contributed to success or failure.

To address these limitations, researchers from Ant Group, Renmin University of China, and an individual author have introduced a novel approach called Information Gain-based Policy Optimization (IGPO). This framework offers a simple yet highly effective way to provide continuous and intrinsic feedback during the training of multi-turn LLM agents. IGPO views each interaction turn as a step where the agent gathers more information about the correct answer. It then defines a reward for each turn based on how much the policy’s confidence in producing the correct answer increases. This is a significant departure from previous methods that either needed external reward models or complex simulations, which can be costly and unstable.

The core idea behind IGPO is to derive these intrinsic rewards directly from the model’s own understanding and belief updates. By combining these “turn-level” information gain rewards with the traditional “outcome-level” rewards (which still ensure the final answer is correct), IGPO creates a rich and dense stream of feedback for the agent. This dense reward trajectory helps the agent learn more efficiently and effectively, especially in long, multi-step tasks.

Extensive experiments were conducted on various benchmarks, both familiar (in-domain) and new (out-of-domain), involving search-based agents. The results consistently showed that IGPO outperformed existing strong methods in multi-turn scenarios. It achieved higher accuracy and demonstrated improved “sample efficiency,” meaning it could learn more effectively from less data. This is particularly beneficial for smaller language models, which often struggle more with complex queries and sparse rewards.

One of the key advantages highlighted by the research is IGPO’s ability to mitigate “advantage collapse.” In situations where all generated responses are either entirely wrong or entirely correct, traditional outcome-based methods provide no useful learning signal. IGPO, however, ensures that every step contributes to learning by providing a valid signal based on information gain, even when the final answer isn’t perfect. This leads to more stable and faster learning dynamics.

The paper also includes a theoretical analysis, suggesting that maximizing turn-level information gain helps to minimize the accumulation of errors throughout a multi-turn reasoning process. This provides a fundamental guarantee that IGPO’s dense, turn-level signals lead to more confident and successful reasoning trajectories.
