Enhancing Language Models for Music Questions with Specialized Knowledge

TLDR: MusT-RAG is a new framework that significantly improves Large Language Models (LLMs) for text-based music question answering. It uses Retrieval Augmented Generation (RAG) by introducing MusWikiDB, a specialized music-focused database, and by incorporating external context during both inference and fine-tuning. This approach allows LLMs to access and utilize specific music knowledge, leading to much higher factual accuracy and better contextual understanding compared to traditional methods, even outperforming models like GPT-4o in music-specific tasks.

Large Language Models (LLMs) have shown incredible abilities across many fields, but they often struggle with music-related questions. This is mainly because their training data contains only a small amount of music-specific knowledge. To tackle this challenge, researchers have introduced MusT-RAG, a new framework designed to make general-purpose LLMs much better at answering text-based music questions.

MusT-RAG stands for MUSical Text Question Answering with Retrieval Augmented Generation. At its core, it uses a technique called Retrieval Augmented Generation (RAG). Imagine an LLM trying to answer a question; instead of relying only on what it remembers from its initial training, RAG allows it to look up relevant information from an external knowledge source, much like someone taking an open-book exam. This external information then helps the LLM generate more accurate and contextually relevant answers.

The MusT-RAG framework introduces two key innovations to optimize RAG for the music domain. First, it proposes MusWikiDB, a specialized vector database specifically built for music-related content. Unlike general databases like Wikipedia, MusWikiDB is curated to contain only music-specific information, making the retrieval process more efficient and relevant for music questions. Second, MusT-RAG uses this external context not just when the model is generating an answer (inference) but also during its training phase (fine-tuning). This ‘RAG-style fine-tuning’ helps the LLM learn how to effectively use external information, improving its understanding and ability to generate coherent responses within a specific context.

MusWikiDB: A Dedicated Music Knowledge Base

MusWikiDB was created by gathering music-related content from Wikipedia across seven categories: artists, genres, instruments, history, technology, theory, and forms. This ensures a broad coverage of music knowledge. The content was carefully processed, split into small, manageable segments (passages), and indexed using an effective algorithm called BM25. This allows for quick and accurate retrieval of information. While MusWikiDB is smaller than a general Wikipedia corpus, its exclusive focus on music makes it significantly more effective and computationally efficient for music-related queries.

ArtistMus: A New Benchmark for Music QA

Existing music question-answering benchmarks often lack detailed information about artists, albums, and collaborations – the kind of metadata crucial for everyday music listening. To fill this gap, the researchers developed ArtistMus. This new benchmark focuses specifically on artist-related questions, covering aspects like biography, career, discography, artistry, and collaborations. It includes both factual questions (e.g., dates, names) and contextual questions (requiring reasoning across multiple pieces of information), providing a comprehensive way to evaluate LLMs’ understanding of music artists.

Performance and Impact

Experiments with MusT-RAG showed impressive results. When tested on the ArtistMus benchmark (in-domain data) and TrustMus (out-of-domain data), MusT-RAG significantly outperformed traditional fine-tuning methods and even advanced models like GPT-4o in factual accuracy. For instance, MusT-RAG demonstrated a 15.0% higher factual performance compared to GPT-4o on the ArtistMus benchmark. It also showed strong generalization capabilities, improving performance on out-of-domain music questions.

The success of MusT-RAG highlights the power of combining LLMs with specialized external knowledge. By providing a dedicated music database and teaching the models how to effectively use this context during both training and inference, MusT-RAG makes LLMs much more capable in the complex world of music question answering. This work not only offers a robust framework but also contributes valuable resources like MusWikiDB and the ArtistMus benchmark to the research community, paving the way for more accurate and domain-aware LLMs in music understanding.
