Enhancing E-commerce Visual Search with Adaptive Intent Mining

TLDR: The REVISION framework optimizes e-commerce visual search by addressing the “User–SearchSys Intent Discrepancy.” It uses large vision-language models in an offline stage to mine implicit user intents from historical no-click data and generate actionable strategies. In the online stage, a trained model dynamically applies these strategies to real-time queries, significantly reducing no-click rates and improving key e-commerce metrics like CTR and order volume.

In the bustling world of e-commerce, visual search has become a cornerstone for platforms like Taobao. Users often upload images to find products, but a significant challenge persists: many searches result in no clicks. This phenomenon, termed the ‘User–SearchSys Intent Discrepancy,’ highlights a gap between what users implicitly want and what the search system delivers. Traditional visual search systems often struggle to understand these diverse and unstated user intentions, leading to limited adaptability and a less-than-ideal user experience.

Addressing this critical issue, researchers from Alibaba Group have introduced a novel framework called REVISION. This innovative system aims to optimize e-commerce visual search by intelligently mining implicit user intents and dynamically adapting search strategies. REVISION integrates both offline reasoning and online decision-making, creating a powerful, end-to-end intelligent optimization solution.

How REVISION Works: A Two-Stage Approach

The REVISION framework operates in two synergistic stages: an offline stage for intent mining and an online stage for real-time strategy optimization.

Offline Stage: Uncovering Hidden Intents

The offline stage is designed to systematically identify and understand the reasons behind no-click requests from historical data. It constructs a periodic pipeline that aggregates similar no-click queries. Leveraging advanced large models, specifically Qwen2.5VL-72B for visual analysis and Qwen3-30B-A3B for text-based reasoning, REVISION analyzes query images, product metadata (like price and title), and even human-defined rules. This comprehensive analysis helps infer optimal suggestions for refining platform strategies. These suggestions are then organized using a hierarchical clustering algorithm, creating a curated list of actionable tools for the search system.

Online Stage: Adaptive Strategy Execution

The insights gained from the offline stage are then used to train REVISION-R1-3B, a vision-language model. In the online stage, this trained model performs a holistic analysis of real-time user query images and associated historical product results. It dynamically predicts optimization plans, selecting and executing appropriate tools from the predefined list across the search pipeline. This mechanism transforms the visual search system from a simple image-to-image matching tool into an integrated framework capable of understanding implicit user intent and supporting multi-tool collaborative retrieval.

Addressing Key Challenges

REVISION tackles two primary challenges in visual search: the difficulty of mining implicit intents from massive data and the need for dynamic online strategy optimization. Traditional methods often rely on time-consuming manual annotations or predefined, constrained rules, which lack scalability and adaptability. By integrating large models, REVISION automates and enhances the discovery of user intents, moving beyond static, rule-based approaches to a more flexible and intelligent system.

Impressive Results and Impact

The effectiveness of REVISION has been validated through extensive experiments and online A/B tests on Taobao Visual Search. The results are compelling:

  • The ratio of no-click queries decreased by 13.91% for the triggered subset.
  • Click-Through Rate (CTR) increased by 10.73%.
  • Order volume saw a rise of 13.60%.
  • Gross Merchandise Value (GMV) increased by 10.73%.

Furthermore, human evaluations confirmed a significant improvement in search quality, with top-1 relevance improving by 37.99% and top-4 relevance by 34.21% compared to the traditional pipeline. REVISION-R1 also demonstrated superior performance against other closed-source models like GPT-4o and Gemini 2.5 Pro in terms of thinking content and answer accuracy.

This framework offers a streamlined paradigm for integrating large models with traditional search systems, enabling end-to-end intelligent optimization across information aggregation and user interaction. It seamlessly integrates with existing infrastructure, achieving low latency while effectively reducing the no-click rate and enhancing the overall user experience.
