Enhancing Conversational Recommender Systems with Smart Data Augmentation

Expanding the set of positive labels through data augmentation is an intuitive way to tackle this problem. Yet, for CRSs, this approach comes with its own set of difficulties: how to ensure the newly added items are semantically relevant to the user’s preferences, and how to preserve the collaborative information (like common user trends) that is crucial for effective recommendations.

A Novel Data Augmentation Framework

Researchers have proposed a new data augmentation framework to address these challenges. This framework operates in two main stages: data synthesis and model training.

The first stage, **Data Synthesis**, focuses on creating a richer set of training labels. It begins with an LLM-based semantic retriever. This tool identifies a diverse range of potentially relevant items by analyzing the semantic similarity between the user’s dialogue context and the descriptions of items. Crucially, this initial retrieval step deliberately avoids considering collaborative information, which helps to reduce biases, such as the tendency to over-recommend popular items. Only items with a high relevance score (above 3.5 in their experiments) are kept as augmented labels, forming a new, expanded dataset.

The second stage is the **Model Training Stage**, which employs a two-stage training strategy. First, the recommender system is pre-trained using the newly created augmented dataset. This step is vital for teaching the model to understand the semantic relationships between user preferences and items, exposing it to a wider variety of relevant items. After this semantic-focused pre-training, the recommender is fine-tuned using the original, real-world dataset. This fine-tuning step is where collaborative information, reflecting real-world user behaviors and trends, is integrated. The framework also allows for a ‘label smoothing’ term to be introduced, offering a controllable way to balance the system’s reliance on semantic relevance versus collaborative information.

The effectiveness of this approach was rigorously tested on two widely used conversational movie recommendation datasets, ReDial and INSPIRED, using various backbone recommender models like BARCOR, UniCRS, and Llama2. The evaluations were conducted both with offline datasets and a user simulator that mimics real human interactions.

The results were consistently positive: the proposed method significantly improved the recommendation performance across all tested models and evaluation settings. It also outperformed other data augmentation techniques and LLM-powered baselines. Notably, even when using smaller models, this approach achieved superior performance compared to strong proprietary large language models (like GPT-3.5 and GPT-4o) in zero-shot settings, underscoring the importance of dedicated training.

Further analysis revealed several key insights. The augmented data demonstrably improved the semantic relevance of the recommendations, directly addressing the false negative issue. The two-stage training process was crucial for effectively capturing collaborative information, leading to more appropriate recommendations. The initial retrieval step, by focusing solely on semantic relevance, allowed the system to cover a wider range of items, including less popular ‘long-tail’ items, thereby reducing popularity bias. Finally, the quantity of synthetic data positively correlated with performance, and the LLM relevance scorer proved essential for filtering out noisy data, ensuring the quality of the augmented labels.
