Enhanced NIRMAL Optimizer Improves Deep Learning Stability with Damped Nesterov Acceleration

TLDR: The Enhanced NIRMAL optimizer, an improved version of the chess-inspired NIRMAL, incorporates a damped Nesterov acceleration mechanism to boost convergence stability. Evaluated against Adam, SGD with Momentum, Nesterov, and original NIRMAL on MNIST, FashionMNIST, CIFAR-10, and CIFAR-100, Enhanced NIRMAL achieved the lowest test loss and competitive accuracy on the complex CIFAR-100 dataset, demonstrating superior generalization and stability, particularly for challenging deep learning tasks.

Deep learning models, which power everything from image recognition to natural language processing, rely heavily on efficient optimization algorithms to learn effectively. These algorithms are crucial for minimizing errors and ensuring that models can generalize well to new, unseen data. While popular optimizers like Adam and Stochastic Gradient Descent (SGD) with Momentum are widely used, they often face challenges such as slow convergence or sensitivity to fine-tuning their settings.

Addressing these challenges, a new study introduces the Enhanced NIRMAL (Novel Integrated Robust Multi-Adaptation Learning) optimizer. This advanced optimizer builds upon the foundation of the original NIRMAL, which itself was inspired by the strategic movements of chess pieces. The core innovation in Enhanced NIRMAL is the integration of an (α, r)-damped Nesterov acceleration mechanism, designed to significantly improve convergence stability, especially when dealing with complex datasets.

The original NIRMAL optimizer incorporates five distinct strategies, each likened to a chess piece:

Wazir (Gradient Descent)

This represents the direct application of the gradient, guiding immediate parameter updates towards minimizing the loss.

Elephant (Momentum)

Similar to momentum in physics, this component helps accelerate convergence in consistent directions, smoothing out erratic movements during training.

Knight (Stochastic Perturbations)

This introduces controlled random noise, enabling the optimizer to escape shallow local minima and explore the loss landscape more effectively, preventing it from getting stuck.

Camel (Adaptive Learning Rate Scaling)

This dynamically adjusts the learning rate for each parameter based on its historical gradient magnitudes, ensuring appropriate step sizes throughout the training process.

Horse (Non-linear Momentum Transformation)

This applies a non-linear transformation to the momentum term, which can further enhance stability and provide better control over the magnitude of updates.

Enhanced NIRMAL takes these strategies and adds the damped Nesterov acceleration. This damping factor, which decreases over time, helps to reduce oscillations during training, leading to more stable and reliable convergence. The researchers evaluated Enhanced NIRMAL against several established optimizers, including Adam, SGD with Momentum, Nesterov, and the original NIRMAL. The comparison was conducted across four widely used image classification datasets: MNIST, FashionMNIST, CIFAR-10, and CIFAR-100, using specially designed convolutional neural network (CNN) architectures for each.

The results of this comprehensive evaluation revealed some key insights. On simpler datasets like MNIST and FashionMNIST, the original NIRMAL optimizer performed exceptionally well, often slightly outperforming Enhanced NIRMAL and Adam. However, the true strength of Enhanced NIRMAL became apparent on more complex datasets. For instance, on CIFAR-100, Enhanced NIRMAL achieved the lowest test loss and a highly competitive test accuracy, nearly matching the performance of SGD with Momentum, which also showed strong robustness across various datasets. This superior performance on complex tasks highlights the effectiveness of the damped Nesterov acceleration in improving generalization and stability.

In contrast, the Nesterov optimizer consistently struggled, particularly on the CIFAR datasets, indicating its limitations in these scenarios. The study concludes that Enhanced NIRMAL offers significant advantages in terms of stability and generalization, especially for challenging deep learning tasks. While the damping mechanism might introduce a slight overhead on simpler problems, its benefits on complex datasets are clear.

Future research aims to further optimize the hyperparameters of Enhanced NIRMAL using advanced search methods, extend its evaluation to even larger and more diverse datasets like ImageNet, and explore adaptive damping schedules to strike an optimal balance between stability and training speed.
