Enhanced Gazelle Algorithm Tackles Complex Optimization Challenges

TLDR: Researchers developed MSIGOA, an improved Gazelle Optimization Algorithm, to better solve complex optimization problems. It uses an iteration-based framework for balanced exploration and exploitation, adaptive parameter tuning for flexibility, and a dominant population-based restart mechanism to avoid local optima. Tested on benchmarks and engineering problems, MSIGOA consistently showed faster convergence, higher solution quality, and greater robustness than the original GOA and other advanced algorithms.

Optimization problems are everywhere in our daily lives and in various industries, from engineering to medicine. These challenges often require finding the best possible solution with limited resources and specific rules. Traditional optimization methods, while useful for certain problems, often struggle with complex, real-world scenarios that involve non-linear relationships, multiple constraints, or many possible solutions.

This is where metaheuristic algorithms come in. These smart algorithms, often inspired by natural or social phenomena, offer a flexible way to tackle complex optimization problems. They don’t need detailed mathematical information about the problem and can use randomness to avoid getting stuck in less-than-ideal solutions. They aim to find very good, or even the best, solutions within a reasonable timeframe.

One such nature-inspired algorithm is the Gazelle Optimization Algorithm (GOA), introduced in 2022. It mimics the survival behaviors of gazelle herds, particularly how they forage and escape predators. The original GOA, however, had some limitations. It struggled to balance exploring new areas for solutions (exploration) and refining existing good solutions (exploitation). Also, there wasn’t enough information sharing among the gazelle population, which could lead the algorithm to get trapped in local optimal solutions, meaning it found a good solution but not the absolute best one.

Introducing MSIGOA: A Smarter Approach to Optimization

To overcome these shortcomings, Qi Diao, Chengyue Xie, Yuchen Yin, Hoileong Lee, and Haolong Yang have developed a new and improved version called the Multi-Strategy Improved Gazelle Optimization Algorithm (MSIGOA). This enhanced algorithm introduces several clever strategies to make it more effective and robust. You can read the full research paper for more details here.

The core of MSIGOA’s improvements lies in three main mechanisms:

Iteration-based Updating Framework (IBUF)

Unlike the original GOA, which randomly switches between exploration and exploitation, IBUF intelligently guides the search process. In the early stages, it focuses on broad exploration to find diverse potential solutions. In the middle, it balances both exploration and refining solutions. Towards the end, it concentrates on fine-tuning to achieve high accuracy. This structured approach ensures a smoother and more effective optimization process.

Adaptive Parameter Tuning Strategy (APTS)

This strategy makes the algorithm more adaptable by dynamically adjusting its parameters. It modifies how the “Brownian motion” (uniform, controlled steps) and “Lévy flight” (small steps with occasional long jumps) mechanisms work. This adaptive tuning helps MSIGOA maintain a good balance between exploring new areas and exploiting promising ones, preventing premature convergence and enhancing its global search capability.

Dominant Population-Based Restart Mechanism (DPRM)

The original GOA lacked sufficient information exchange among its population. DPRM addresses this by introducing a restart mechanism that leverages the “dominant population” – the top-performing individuals. By considering the optimal agent, the weighted position of the dominant population, and the agent itself, DPRM enriches population diversity. This helps the algorithm escape local optima and guides the search towards more promising regions, significantly improving the quality of solutions.

Demonstrated Superior Performance

The effectiveness of MSIGOA was rigorously tested using two widely recognized benchmark sets, CEC2017 and CEC2022, which include various types of complex functions. It was also applied to several real-world engineering design problems, such as the tension/compression spring design, pressure vessel design, and welded beam design. In these tests, MSIGOA consistently outperformed the basic GOA and several other advanced optimization algorithms.

The results showed that MSIGOA achieves faster convergence, meaning it finds optimal solutions more quickly. It also delivers higher quality solutions and demonstrates stronger robustness across different optimization environments. For instance, on the CEC2017 and CEC2022 test sets, MSIGOA performed as well as or better than GOA in 92.2% and 83.3% of functions, respectively, and outperformed other algorithms in 88.57% and 87.5% of functions.

In engineering design problems, MSIGOA found more optimal solutions, leading to minimized costs and improved designs for the spring, pressure vessel, and welded beam. This highlights its practical applicability for complex real-world challenges that require a careful balance between exploring new possibilities and refining existing solutions.

While MSIGOA shows great promise, the researchers acknowledge that there’s always room for further improvement, especially in handling some specific functions and reducing computational time for extremely complex problems. Future work will explore its potential in areas like machine learning, medicine, finance, and automation, and investigate hybrid strategies for multi-objective optimization.
