Efficient Data Generation for Integrated Circuit Thermal Simulations

TLDR: A new algorithm called BlocKOA significantly accelerates the generation of high-fidelity training data for integrated circuit (IC) thermal simulations. By combining block Krylov methods for initial basic solutions and operator action to derive heat sources, BlocKOA achieves up to a 420-fold speedup and higher precision compared to existing methods, making data-driven IC thermal analysis more practical and efficient.

Integrated circuits (ICs) are the brains of modern electronics, and their performance, reliability, and lifespan are heavily influenced by temperature. This makes thermal optimization a crucial step in the IC design process, often requiring numerous numerical thermal simulations. Traditionally, these simulations are computationally intensive, taking significant time and resources.

Recent advancements have seen data-driven approaches, particularly neural operators (NOs), emerge as powerful tools to speed up IC thermal simulations. These models, once trained, can predict IC temperature distributions in milliseconds, a stark contrast to conventional methods. However, a major hurdle for these promising techniques is their hunger for high-fidelity training data – vast amounts of chip parameters and temperature distributions are needed, which are themselves expensive and time-consuming to generate.

Introducing BlocKOA: A Novel Approach to Data Generation

To tackle this challenge, researchers have developed a new algorithm called Block Krylov and Operator Action, or BlocKOA. This innovative method is specifically designed for IC applications and aims to simultaneously accelerate the data generation process and enhance the precision of the generated data.

BlocKOA operates in three main steps:

1. Basic Solutions Generation: It starts by using a block Krylov algorithm. This method leverages the inherent structure of the heat equation in ICs to quickly obtain a small set of ‘basic solutions’ by solving multiple related linear systems at once. This significantly reduces redundant computations compared to solving each system independently.

2. Temperature Distributions Generation: Once these basic solutions are obtained, BlocKOA combines them in various ways, often with a small amount of noise, to generate a large number of diverse temperature distributions. These new distributions are guaranteed to satisfy the physical constraints of the heat equation, ensuring their realism and usefulness for training data.

3. Operator Action: Finally, instead of solving complex linear systems to find heat sources, BlocKOA directly applies heat operators to these newly generated temperature distributions. This ‘operator action’ is a much faster and more precise process, essentially a matrix-vector multiplication, which avoids the computational cost and potential errors associated with iterative solvers.

Unprecedented Speed and Accuracy

The theoretical analysis of BlocKOA shows that its time complexity is one order lower than existing methods. Experimental results strongly validate this, demonstrating a remarkable 420-fold speedup in generating thermal simulation data for 5000 chips with varying physical parameters and IC structures. Furthermore, BlocKOA achieves machine precision (an error lower than 1E-16), a level of accuracy that is practically impossible with traditional iterative methods that introduce errors due to termination conditions.

What’s particularly impressive is that data-driven approaches trained on data generated by BlocKOA exhibit comparable performance to those using data from existing, much slower methods, even when BlocKOA uses only a fraction (e.g., 4%) of the generation time. This means designers can get high-quality training data much faster, accelerating the development and deployment of advanced thermal simulation tools.

The research, titled “Accelerating IC Thermal Simulation Data Generation via Block Krylov and Operator Action,” was conducted by Hong Wang, Wenkai Yang, Jie Wang, Huanshuo Dong, Zijie Geng, Zhen Huang, Depeng Xie, Zhezheng Hao, and Hande Dong from the University of Science and Technology of China. You can find the full paper here.

In conclusion, BlocKOA represents a significant leap forward in IC thermal simulation data generation. By offering unparalleled speed and precision, it removes a major bottleneck for data-driven algorithms, paving the way for more efficient and accurate IC design processes.
