TLDR: EcoScale-Net is a new deep learning model designed for accurate and efficient classification of long-sequence 12-lead ECGs. It addresses the computational challenges of previous models like OS-CNN by using a hierarchical architecture and 1×1 bottleneck convolutions. This design significantly reduces computational cost (90% fewer parameters, 99% fewer FLOPs) while improving diagnostic accuracy (2.4% higher F1-score) on the CODE-15% dataset. EcoScale-Net enables state-of-the-art ECG analysis suitable for real-time deployment on commodity hardware.
Cardiovascular disease remains the leading cause of death globally, making accurate and early detection of cardiac abnormalities crucial. Electrocardiograms (ECGs) are a widely used non-invasive tool for this purpose. However, manual interpretation of 12-lead ECGs is prone to errors due to noise and variability between observers. This has led to a growing interest in automated ECG analysis using deep learning.
The Challenge with Long ECG Sequences
Traditional convolutional neural networks (CNNs) often struggle with the long sequences characteristic of ECG signals because they rely on manually tuned kernel sizes or dilations. This approach doesn’t scale well. To address this, the Omni-Scale CNN (OS-CNN) was introduced. It aimed to avoid manual tuning by using prime-sized kernels, inspired by Goldbach’s conjecture, to cover every possible receptive-field length. While innovative, this exhaustive design led to a significant increase in computational cost and parameters, making it difficult to build deeper or wider models.
Introducing EcoScale-Net: A More Efficient Approach
Researchers have now developed the Efficient Convolutional Omni-Scale Network, or EcoScale-Net, as a hierarchical and more efficient alternative to OS-CNN. EcoScale-Net maintains full receptive-field coverage, which is essential for comprehensive analysis, but eliminates the redundancy that plagued its predecessor. This allows for a deeper and wider network design, enhancing feature extraction capabilities.
Key Innovations of EcoScale-Net
EcoScale-Net introduces two primary architectural modifications:
-
Hierarchical Receptive Field Cascading: Instead of using large kernels at every stage, EcoScale-Net progressively reduces the maximum kernel length required at deeper layers. This means that as the signal is down-sampled through the network, smaller maximum kernels are used, avoiding redundant large filters while still ensuring complete coverage of the receptive field.
-
Channel-Efficient Fusion with 1×1 Bottlenecks: To prevent the explosive growth in the number of channels (which contributes to high computational cost), EcoScale-Net incorporates 1×1 bottleneck convolutions before and after each Omni-Scale block. The first 1×1 convolution reduces the number of channels, and the second restores them, effectively curtailing channel growth and fusing multi-scale features without adding to the receptive field’s temporal span.
Performance and Efficiency
Evaluated on the large-scale CODE-15% ECG dataset, EcoScale-Net demonstrated impressive results. Compared to OS-CNN, it achieved a remarkable 90% reduction in parameters and a 99% reduction in FLOPs (floating-point operations), which are measures of computational cost. Crucially, this efficiency did not come at the expense of accuracy; EcoScale-Net actually improved the macro-averaged F1-score by 2.4%.
The model achieved state-of-the-art accuracy for long-sequence ECG classification, with F1-scores of 93.9% for positive-only multi-label diagnosis and 94.7% for binary normal/abnormal screening. These results highlight that EcoScale-Net delivers high accuracy at a fraction of the computational cost, making it suitable for real-time deployment on standard hardware and even edge devices.
An ablation study further confirmed the effectiveness of its design choices, showing that both the Omni-Scale Convolution and the 1×1 convolutions are critical for its superior performance and efficiency.
