DFQ-ViT: Enabling Efficient Vision Transformers on Edge Devices Without Original Data

TLDR: DFQ-ViT is a novel method for quantizing Vision Transformers (ViTs) to make them smaller and faster for devices with limited resources. It achieves this without needing access to original training data or fine-tuning. The method uses an ‘Easy to Hard’ strategy to generate high-quality synthetic data and an ‘Activation Correction Matrix’ to align intermediate model activations, significantly improving performance over existing data-free methods and sometimes matching real-data quantization.

Vision Transformers (ViTs) have emerged as powerful tools in computer vision, excelling in tasks like image classification and object detection. However, their large size and high computational demands pose significant challenges for deployment on devices with limited resources, such as mobile phones or edge computing hardware. To address this, model compression techniques like quantization are crucial. Quantization reduces the precision of model weights and activations, making models smaller and faster, but often at the cost of accuracy.

Traditional quantization methods typically require access to the original training data for fine-tuning or calibration to mitigate performance degradation. This presents a major hurdle in scenarios where data is sensitive (e.g., medical imaging) or simply unavailable due to privacy concerns or data ownership issues. Furthermore, retraining models demands substantial computational resources and time, which is impractical for resource-constrained edge devices.

Introducing DFQ-ViT: A Data-Free Solution

A new research paper, DFQ-ViT: Data-Free Quantization for Vision Transformers without Fine-tuning, proposes a novel pipeline for Data-Free Quantization for Vision Transformers. This method allows for the efficient quantization of ViTs without needing access to the original training data and, crucially, without requiring any fine-tuning or retraining of the model. This significantly lowers deployment barriers and aligns with principles of ‘Green Learning’ by improving energy efficiency.

DFQ-ViT tackles two primary issues identified in existing data-free quantization (DFQ) methods for ViTs. First, current methods often fail to generate synthetic samples that adequately capture both the global and local features of real data, which are essential for effective model calibration. Second, there’s a noticeable discrepancy in the intermediate layer activations between quantized and full-precision models during inference, leading to performance drops.

The Easy to Hard (E2H) Strategy for Synthetic Data

To generate higher-quality synthetic samples, DFQ-ViT introduces an ‘Easy to Hard’ (E2H) sample synthesis strategy. Inspired by curriculum learning, this approach starts by synthesizing samples that capture the broad, global structures of objects (the ‘easy’ part) using larger image crops. As the synthesis process progresses, it gradually refines these samples by focusing on smaller crops, thereby enhancing local details like textures and edges (the ‘hard’ part). This progressive refinement ensures that the synthetic data better approximates the complexity and characteristics of real-world images, leading to more effective model calibration.

Correcting Activations with the Activation Correction Matrix (ACM)

Even with high-quality synthetic data, quantization errors can accumulate across the layers of a deep neural network, impacting the final performance. To counteract this, DFQ-ViT introduces an ‘Activation Correction Matrix’ (ACM). This matrix is calculated during a one-time calibration phase using the synthetic samples. During the actual inference, the ACM is used to adjust the intermediate layer activations of the quantized model, bringing them closer to the activation patterns of the full-precision model. This correction significantly reduces quantization errors without adding any retraining overhead, making the quantized model more accurate and reliable.

Remarkable Performance and Efficiency

Extensive experiments demonstrate that DFQ-ViT achieves superior performance compared to existing data-free quantization methods. In some cases, its performance even matches or surpasses models quantized using real data. For instance, on the DeiT-T model with 3-bit weight quantization, DFQ-ViT showed a 4.29% higher Top-1 accuracy than the previous state-of-the-art method. This remarkable achievement means that high-quality quantization can be performed even when original data is unavailable, which is a game-changer for deploying ViTs in privacy-sensitive or resource-constrained environments.

Furthermore, the computational overhead introduced by DFQ-ViT is minimal. The ACM adds a negligible number of parameters to the model, ensuring that the overall model size and inference speed remain virtually unchanged. The time spent on synthetic sample generation is comparable to existing methods, with only a slight, non-substantial increase in calibration time due to ACM computation. This makes DFQ-ViT a highly efficient and practical solution for real-world applications.

In conclusion, DFQ-ViT offers a robust and efficient solution for deploying Vision Transformers on edge devices. By intelligently synthesizing data and correcting internal model behaviors, it overcomes critical challenges in data-free quantization, paving the way for broader adoption of powerful ViT models in diverse, resource-limited settings.
