D-SCoRE: A New Approach to Generating High-Quality QA Datasets for LLM Fine-Tuning

TLDR: D-SCoRE is a training-free pipeline that uses LLMs and prompt engineering to generate diverse, high-quality question-answering (QA) datasets from any text. It integrates document processing, segmentation, Chain-of-Thought (CoT) reasoning, and structured export to create QA-CoT datasets for domain-aware supervised fine-tuning (SFT) of LLMs. D-SCoRE outperforms human-annotated datasets in many domains, especially with implicit questions and reasoning traces, offering a scalable and efficient solution for addressing the scarcity of quality QA data.

High-quality question-answering (QA) datasets are crucial for training large language models (LLMs) to perform well in specific fields like education or healthcare. However, creating these datasets manually is very expensive and time-consuming, which limits how much data can be produced. Existing automated methods often fall short in terms of diversity, cost, and control over question complexity.

To tackle these challenges, researchers Weibo Zhou, Lingbo Li, and Shangsong Liang have introduced a new, training-free system called D-SCoRE. This pipeline uses LLMs and clever prompt engineering to generate a wide variety of high-quality QA datasets from any text. D-SCoRE stands for Document-centric processing, Segmentation, CoT Reasoning (Chain-of-Thought), and structured Export. It’s designed to create QA-CoT datasets specifically for fine-tuning LLMs to understand particular domains better.

D-SCoRE incorporates several control mechanisms to boost diversity and relevance. These include transforming semantic roles, balancing different question types, and generating counterfactual (what-if) scenarios. These features help overcome the limitations of current QA generation methods. LLMs that have been fine-tuned using D-SCoRE-generated datasets have shown better performance across most domains when compared to models trained on human-annotated datasets like SQuAD and Covid-QA.

How D-SCoRE Works: The Core Pipeline

At its heart, D-SCoRE operates through a three-stage pipeline, wherein an LLM is used to create or refine QA elements:

  • Stage 1: QA Generation: This stage focuses on creating QA pairs from individual text segments. It aims for diverse questions by mixing explicit questions (directly answerable from the text) and implicit questions (requiring inference or combining information). The LLM is guided to identify key information for explicit questions and use reasoning for implicit ones, also rephrasing questions to add variety without changing the answer.
  • Stage 2: QA Quality Control: To ensure accuracy, this stage rigorously checks the generated QA pairs. The LLM verifies that each QA pair is strictly based on the source text, preventing any outside knowledge or “hallucinations.” It also confirms that questions are correctly categorized as explicit or implicit. Any miscategorized or inconsistent questions are corrected or regenerated. A rule ensures at least one valid explicit question is generated per text segment.
  • Stage 3: Counterfactual Material Generation: This final stage enhances the dataset’s sophistication by creating alternative, “counterfactual” options for each QA pair. For every question, the LLM generates three plausible but factually incorrect distractor answers that are semantically close to the correct one and rooted in the source text. It also assesses the quality of these distractors and randomizes the position of the correct answer to avoid bias.

Enhancing Quality and Diversity with Control Mechanisms

D-SCoRE includes multi-dimensional control mechanisms to ensure the generated dataset meets high standards for variety, accuracy, and domain relevance:

  • Question Type Control: This mechanism ensures a balanced mix of explicit and implicit questions, guiding the LLM to focus on factual details for explicit questions and reasoning for implicit ones.
  • Diversity Enhancement: To avoid repetitive questions, D-SCoRE uses semantic role transformations to rephrase questions without altering their answers. The creation of counterfactual distractors also adds challenging alternatives, increasing linguistic and semantic variety.
  • Quality Assurance: Strict protocols ensure that QA pairs are firmly rooted in the input text and correctly classified, which helps maintain dataset reliability and reduces errors like hallucinations.

Optional Components for Flexibility

D-SCoRE also offers optional pre-processing and post-processing phases. Pre-processing can divide large texts into smaller, manageable segments, which is useful given LLMs’ context limitations. Post-processing can refine the dataset by checking for coherence, removing duplicates, fixing formatting, or validating against specific schemas for fine-tuning.

Performance and Impact

Experiments evaluated D-SCoRE’s effectiveness using Qwen 4B and 8B models on datasets like SQuAD, SQuADShifts (including Amazon, NYT, Reddit, and New Wiki subsets), and Covid-QA. The results showed that D-SCoRE-generated datasets often matched or surpassed human-annotated “Gold” standards, especially in domains like e-commerce, journalism, and social discourse. All D-SCoRE variants consistently outperformed models that received no supervised fine-tuning (NOSFT).

A key finding was the significant impact of reasoning traces (Chain-of-Thought) embedded in implicit questions. Configurations with implicit questions consistently outperformed those with only explicit questions, highlighting the importance of logical coherence for model proficiency. The study also revealed that a balanced mix of implicit and explicit questions (specifically, 66% implicit and all explicit questions) often yielded robust performance, suggesting an optimal synergy between factual accuracy and deeper reasoning.

D-SCoRE can generate six QA-CoT pairs with four-option counterfactual materials from a 100-200-word text in just 90 seconds using an 8B LLM on consumer-grade hardware. This demonstrates its efficiency and scalability for generating high-quality QA datasets, which can lead to high-performance fine-tuning across various domains.
