Coupled Diffusion for Precise Signal Reconstruction in Inverse Problems

TLDR: Coupled Data and Measurement Space Diffusion Posterior Sampling (C-DPS) is a novel framework that enhances diffusion models for solving inverse problems. It introduces a parallel diffusion process in the measurement space, coupled with the data-space diffusion, enabling the derivation of a closed-form posterior distribution. This eliminates the need for heuristic approximations or constraint tuning, leading to more stable, accurate, and artifact-free signal reconstructions. C-DPS consistently outperforms existing baselines across various inverse problems, including medical imaging, deblurring, and super-resolution.

Inverse problems are fundamental challenges across many scientific and engineering disciplines. Imagine trying to reconstruct a clear image from a blurry photograph, or piecing together a complete medical scan from incomplete data. These are inverse problems: the goal is to recover an unknown original signal from noisy or partial measurements. They are crucial in fields ranging from medical imaging and remote sensing to computational biology.

Recently, diffusion models have emerged as powerful tools for tackling these problems. These models learn to generate data by reversing a gradual noise process. However, existing methods often face significant limitations. They typically either rely on projection-based techniques that enforce measurement consistency through somewhat arbitrary updates, or they approximate the likelihood of the measurements given the signal. Both approaches can lead to issues like visual artifacts, instability, or a failure to accurately represent the original measurements, especially in complex or high-noise scenarios.

To overcome these hurdles, researchers Shayan Mohajer Hamidi, Ben Liang, and En-Hui Yang have introduced a novel framework called Coupled Data and Measurement Space Diffusion Posterior Sampling, or C-DPS. This innovative approach eliminates the need for manual constraint tuning or approximations of how likely a measurement is given a signal. Instead, C-DPS introduces a forward stochastic process in the measurement space, which evolves in parallel with the traditional diffusion process in the data space. This tight coupling allows for the derivation of a precise, closed-form posterior distribution, enabling accurate and recursive sampling based on a well-defined probability distribution.

The core idea behind C-DPS is to treat the data and its measurements as a unified generative process. While the data space process follows the familiar path of gradually adding noise to an unknown signal, the measurement space process starts with the known observation and progressively injects noise in a synchronized manner. This symmetric treatment ensures that both spaces are tightly linked throughout the diffusion trajectory. This elegant coupling is what allows C-DPS to directly integrate the measurement model into the sampling procedure, ensuring consistent Bayesian updates at every step.

A significant advantage of C-DPS is its efficiency. The framework includes a scalable and efficient sampling algorithm based on a pre-whitened conjugate gradient solver. This “matrix-free” implementation means that despite the added complexity of coupling two diffusion processes, the runtime efficiency remains comparable to conventional diffusion methods, with score evaluation (the neural network part) still being the dominant computational cost.

Empirical results have shown that C-DPS consistently outperforms existing state-of-the-art baselines, both qualitatively and quantitatively, across a wide array of inverse problem benchmarks. This includes tasks such as image inpainting (filling in missing parts), deblurring (removing blur), and super-resolution (enhancing image detail) on popular datasets like FFHQ and ImageNet. The method demonstrates superior measurement fidelity, meaning its reconstructions better satisfy the original measurement model, and more accurately recovers the true underlying signal distribution.

Furthermore, C-DPS has been successfully applied to medical imaging inverse problems, including undersampled MRI reconstruction, sparse-view CT reconstruction, and medical image super-resolution. In these critical applications, where accurate recovery of fine details is paramount, C-DPS has shown robust and accurate performance, outperforming other training-free diffusion-based methods.
